본 연구는 고대 한국의 제철 유적에서 출토된 슬래그의 화학적 조성을 기반으로 지역별 분류 가능성을 머신러닝 기법을 통해 검토하였다. 제철 슬래그는 철을 제련하거나 가공하는 과정에서 발생하는 부산물로 물리적·화학적 안정성 덕분에 고고학적 연구에서 중요한 자료로 활용된다. 본 연구에서는 충청, 전라, 경상 지역의 슬래그를 대상으로 XRF 분석을 통해 주요 성분인 Na₂O, MgO, Al₂O₃, SiO₂, P₂O₅, K₂O, CaO, TiO₂, MnO, FeO의 데이터를 수집하여 총 294개의 데이터를 분석하였다. 이를 바탕으로 주성분 분석-선형 판별 분석(PCA-LDA), K-최근접 이웃(KNN), 서포트 벡터 머신(SVM), 결정 트리(DT), 랜덤 포레스트(RF) 다양한 머신러닝 분류 모델을 적용해 분류 성능을 비교하였다.
분석 결과, PCA-LDA는 77%의 예측 정확도를 보였으며, KNN과 SVM은 각각 63%와 67%로 유사한 성능을 나타냈다. DT 모델은 최대 깊이 7에서 87%의 예측 정확도를 기록하며 가장 높은 분류 성능을 보였고 RF 모델은 77%의 예측 정확도를 나타냈다. 특히 DT 모델은 충청 지역에서 높은 예측 성능을 보여 지역적 특성이 분류 모델의 성능에 중요한 영향을 미침을 확인할 수 있었다. 다만, 경상 지역 데이터는 다른 지역과 중첩되는 경향을 보였으며 이는 모델의 분류 정확도를 낮추는 요인으로 작용하였다.
본 연구는 고대 제철 기술의 지역적 차이를 머신러닝 분류 모델을 통해 규명하고 슬래그 화학 분석 데이터를 기반으로 고대 제철 문화의 지역별 특성과 상호 관계를 심도 있게 이해하고자 하였다. 특히 고고학적 연구와 데이터 기반 접근법을 결합하여 문화유산 분석 분야에서 머신러닝의 실효성과 가능성을 제시하였다. 이러한 결과는 고대 한국의 제철 유적에 대한 종합적인 해석을 지원하며 슬래그 데이터 아카이브 구축과 원산지 판별 기법의 정교화에 기여할 수 있다. 향후 데이터 양이 증가한다면 다양한 지역적 특성을 반영한 더 나은 분류 모델 개발이 가능할 것이다. 또한 본 연구는 고대 제철 기술 연구의 새로운 방향성을 제시하며 문화유산 연구에서 데이터 과학의 적용 가능성을 더욱 넓히는 데 기여할 것으로 기대된다.

This study examined the possibility of regional classification through machine learning techniques based on the chemical composition of slag excavated from the ironmaking ruins of ancient Korea. Ironmaking slag is a by-product generated in the process of smelting or processing iron and is used as an important data in archaeological research because of its physical and chemical stability. In this study, through XRF analysis of slag in CHUNGCHEONG, JEONRA, and GYEONGSANG areas, data of Na₂O, MgO, Al₂O ₃, SiO₂, P₂O ₅, K₂O, CaO, TiO₂, MnO, and FeO were collected and a total of 294 samples were analyzed. Based on this, classification performance was compared by applying various machine learning models such as PCA-LDA, KNN, SVM, DT, and RF. As a result of the analysis, PCA-LDA showed 77% prediction accuracy, and KNN and SVM showed similar performance at 63% and 67%, respectively. The DT model showed the highest classification performance, recording 87% prediction accuracy at the maximum depth of 7, and the RF model showed 77% prediction accuracy. In particular, the DT model showed high prediction performance in the CHUNGCHEONG area, so it was confirmed that regional characteristics had an important effect on the performance of the classification model. However, the data of the GYEONGSANG area tended to overlap with other regions, which acted as a factor to lower the classification accuracy of the model. This study attempted to investigate regional differences in ancient steelmaking technology through machine learning models and to deeply understand regional characteristics and interrelationships of ancient steelmaking culture based on slag chemical analysis data. In particular, by combining archaeological research and data-based approaches, the effectiveness and possibility of machine learning in the field of cultural heritage analysis were presented. These results support a comprehensive interpretation of ancient Korean steelmaking sites and can contribute to the construction of a slag data archive and the elaboration of the method of determining the origin. If the amount of data increases in the future, it will be possible to develop a better classification model that reflects various regional characteristics. In addition, this study is expected to contribute to further expanding the applicability of data science in cultural heritage research by suggesting a new direction for ancient steelmaking technology research.
