    스마트농업 환경에서는 온도, 습도, CO₂ 등 다양한 환경 센서 데이터가 실시간으로 수집되며 이러한 데이터는 작물 생육 관리와 자동 제어 시스템의 핵심 입력으로 활용된다. 그러나 센서 노후화, 환경 외란, 통신 장애 등으로 인해 센서 이상이 빈번하게 발생하며 이는 제어 시스템의 오작동과 생산성 저하로 이어질 수 있다. 특히 실제 농업 환경에서는 이상 발생 시점과 유형에 대한 명확한 라벨 확보가 어려워 지도학습 기반 이상 탐지 기법의 적용에 한계가 존재한다. 본 연구는 이러한 문제를 해결하기 위해 LSTM-Auto-encoder(AE) 기반 복원 오차(Reconstruction Error) 해석을 활용한 센서 이상 탐지 및 유형 분류 방법을 제안한다. 제안 방법은 정상 데이터만을 사용한 비지도 학습 기반 구조로 라벨이 부족한 스마트농업 환경에 적합하도록 설계되었다. 먼저 정상 시계열 데이터를 이용하여 LSTM-AE를 학습하고 입력과 복원값 간의 복원 오차를 이상 점수로 활용하여 정상·이상 여부를 판별한다. 이후 복원 오차의 통계적 특성(mean, standard deviation, maximum, minimum, delta)을 분석하여 Bias, Drift, Noise, Spike와 같은 대표적인 센서 이상 유형을 분류한다. 실험은 2025년 여수시 돌산읍 테스트베드에서 수집된 온도·습도·CO₂ 데이터를 기반으로 수행되었으며 실제 환경에서 명확한 이상 라벨이 부재한 문제를 보완하기 위해 시뮬레이션 기반 이상 주입 기법을 적용하였다. 실험 결과 정상 데이터의 복원 오차는 0.02 이하의 좁은 구간에 안정적으로 분포하여 정상 패턴이 충분히 학습되었음을 확인하였다. 이상 유형별 분석 결과 Noise 이상은 평균과 분산이 동시에 크게 증가하여 가장 탐지하기 쉬운 유형으로 나타났으며 Drift와 Bias는 누적적·전역적 오차 증가 패턴을 보였다. 반면 Spike 이상은 국소적 오차 특성으로 인해 Normal과의 혼동이 상대적으로 크게 발생하였다. 복원 오차 기반 Feature를 이용한 Random Forest 다중 분류 실험에서는 전체 정확도 52.8%를 기록하여 무작위 분류 기준(20%)을 크게 웃도는 성능을 달성하였다. 또한 threshold 및 epoch 변화에 따른 Ablation Study를 통해 epoch=100, threshold≈0.95 설정이 가장 안정적인 F1-score를 제공함을 확인하였다. 이러한 결과는 복원 오차가 단순 이상 탐지를 넘어 이상 유형 분류를 위한 유의미한 정보로 활용될 수 있음을 실증적으로 보여준다. 본 연구는 스마트농업 환경에 특화된 비지도 학습 기반 이상 탐지·유형 분류 프레임워크를 제시함으로써 센서 신뢰성 향상과 유지보수 효율 증대에 기여할 수 있다. 또한 향후 다변량 시계열 확장, latent space 기반 분류, 온라인 학습 및 자동 임계값 조정 기법과 결합할 경우 AI 기반 스마트팜 자율제어 시스템의 핵심 기반 기술로 활용될 수 있을 것으로 기대된다.

    In smart agriculture environments, various environmental sensors such as temperature, humidity, and CO₂ are continuously monitored and used as critical inputs for crop management and automated control systems. However, sensor anomalies caused by sensor aging, environmental disturbances, and communication failures frequently occur, potentially leading to control malfunctions and reduced productivity. Moreover, in real agricultural settings, it is difficult to obtain accurately labeled anomaly data, which limits the applicability of supervised learning–based anomaly detection methods. This study proposes a sensor anomaly detection and classification framework based on reconstruction error analysis using a Long Short-Term Memory Auto-encoder (LSTM-AE). The proposed approach adopts an unsupervised learning paradigm trained solely on normal data, making it suitable for label-scarce smart agriculture environments. First, an LSTM-AE is trained to learn normal multivariate time-series patterns, and reconstruction error is utilized as an anomaly score to distinguish normal and anomaly states. Subsequently, statistical characteristics of the reconstruction error such as mean, standard deviation, maximum, minimum, and delta are analyzed to classify representative anomaly types including Bias, Drift, Noise, and Spike. Experiments were conducted using temperature, humidity, and CO₂ data collected from a smart agriculture testbed in Dolsan-eup, Yeosu, South Korea, in 2025. To compensate for the lack of labeled anomaly data, simulation-based anomaly injection was employed. Experimental results showed that reconstruction errors of normal data were stably concentrated below 0.02, indicating that the LSTM-AE effectively learned normal temporal patterns. Among anomaly types, Noise exhibited the most distinguishable characteristics due to simultaneous increases in mean and variance, while Drift and Bias demonstrated cumulative and global error shifts, respectively. Spike anomalies, characterized by localized extreme deviations, showed relatively higher confusion with normal samples. A Random Forest classifier using reconstruction error–based features achieved an overall accuracy of 52.8%, significantly outperforming random multi-class classification (20%). Furthermore, an ablation study on threshold and training epochs confirmed that epoch=100 and threshold≈0.96 provided the most stable performance in terms of F1-score. These findings demonstrate that reconstruction error not only serves as an effective anomaly detection metric but also provides meaningful information for anomaly type classification. This study contributes an unsupervised anomaly detection and classification framework tailored to smart agriculture environments, enhancing sensor reliability and maintenance efficiency. With further extensions to multivariate modeling, latent space–based classification, online learning, and adaptive thresholding, the proposed approach can serve as a core technology for future AI-driven autonomous smart farming systems.
