본 논문은 회전체 진동 신호에서 변조 특징을 이용하여 세그먼트 길이를 설계하고, 이를 기반으로 소규모 데이터셋에서 딥러닝을 활용한 고장 진단을 위해 대상 기계의 특징을 보존하면서 학습 데이터를 증가시킬 수 있는 전처리를 제안하였다. 소규모 회전체 진동 데이터에서는 학습에 사용할 수 있는 정상·고장 데이터 수가 제한적이기 때문에, 세그먼트 분할과 같은 학습 데이터량 증가가 필수적이지만, 세그먼트 길이를 임의로 설정할 경우 고장 관련 변조 성분이 충분히 포함되지 않거나, 반대로 불필요하게 긴 구간으로 인해 학습 효율이 저하되는 문제가 존재하였다. 기존 모듈레이션 스펙트럼 기반 분석은 특정 주파수 대역을 사용자가 선택한 후 대역통과 필터와 힐버트 변환을 통해 포락선을 추출하고, 이에 대한 FFT를 수행하여 진폭 변조를 해석하는 절차를 따른다. 그러나 이러한 방법은 분석 대역과 변조 주파수 범위 설정이 대상 기계의 회전수와 결함 메커니즘에 대한 전문가의 경험에 크게 의존하고, 실질적으로 포락선의 진폭 스펙트럼에 집중하여 위상·주파수 변조를 반영하지 못하며, 전체 대역 또는 옥타브, 1/3옥타브 대역과 같은 비교적 넓은 대역을 선택할 경우 여러 반송파에 공통으로 존재하는 약한 변조 성분이 과소평가되는 한계를 지니고 있다. 본 연구에서는 이러한 한계를 극복하기 위하여, 전체 진동 PSD로부터 복수의 반송파 후보를 자동 추출한 뒤, 각 반송파에 대해 협대역 대역통과 필터를 적용하고 힐버트 변환을 수행하여 진폭 및 주파수 변조를 분리 추출하는 변조 특징 기반 전처리 방법을 설계하였다. 각 협대역 신호에 대해 진폭·주파수 모듈레이션 스펙트럼을 각각 계산하고, 정규화한 뒤 곱하여 진폭과 주파수 변조가 동시에 강하게 나타나는 주파수를 동시성 점수로 정의하였다. 또한 캐리어별 AM/FM 공통 피크에 대해 변조 주파수 빈 단위로 투표수를 집계하고, 투표수와 동시성 점수를 결합한 융합 지표를 사용하여 데이터셋 내부에서 통계적으로 유의미하게 반복되는 최소 유효 변조 주파수를 결정하였다. 결정된 최소 유효 변조 주파수는 해당 데이터셋에서 기계 구조와 운전 조건으로부터 기인하는 대표적인 공동 변조 주파수로 해석되며, 그 주기의 두 배를 각각 세그먼트 최소 길이로 정의하였다. 이를 기반으로 원시 진동 신호를 최소 길이 이상이 되도록 50% 중첩 세그먼트화함으로써, 변조 특성을 보존하는 세그먼트화를 수행하였다. 제안한 전처리 및 세그먼트 설계 절차는 TELE, TILT 및 VFD로 구성된 소규모 회전체 진동 데이터셋에 적용되었으며, 동일 데이터에 대해 임의로 세그먼트 길이를 설정한 경우와 비교하였다. 분류 결과, 원신호 기반 STFT와 임의 세그먼트 길이를 사용할 때에는 일부 스플릿에서 모델이 trivial classifier로 수렴하거나 특정 패턴에 과도하게 과적합되는 양상이 관찰되었으나, 제안한 변조 특징 기반 전처리로 산출한 최소 세그먼트 길이를 적용한 경우 분류 정확도와 평가 지표가 향상되었고, 스플릿 간 성능 변동 폭이 감소하여 학습 일관성이 개선되었다. 이는 제안 방법이 기존 모듈레이션 분석의 전문가 의존성과 대역 선택 문제를 완화할 뿐만 아니라, 비전문가도 재현성 있게 적용할 수 있는 세그먼트 설계 지침을 제공함으로써, 소규모 회전체 진동 데이터 환경에서 학습 데이터 증가를 위한 세그먼트화의 최소 단위를 확보하여 딥러닝 기반 고장 진단의 신뢰성 및 물리적 해석 가능성을 동시에 높일 수 있음을 시사한다.

This study proposes a preprocessing method that designs segment length based on modulation features extracted from rotating machinery vibration signals, enabling an increase in the amount of training data while preserving machine-specific characteristics for fault diagnosis using deep learning in small-scale datasets. In such datasets, the number of available normal and faulty samples is inherently limited, making the expansion of training instances through segmentation essential. However, arbitrarily selecting segment length may result in insufficient inclusion of fault-related modulation components or, conversely, excessively long segments that degrade learning efficiency.
Conventional modulation spectrum analysis typically requires the user to select a specific frequency band, apply a bandpass filter and Hilbert transform to obtain the envelope, and perform FFT to analyze amplitude modulation. This approach heavily depends on expert knowledge of machine rotational speed and fault mechanisms when determining the analysis band and modulation frequency range. It also focuses primarily on the amplitude spectrum of the envelope, failing to capture phase and frequency modulation, and tends to underestimate weak modulation components shared across multiple carriers when broad bands such as full-band, octave, or one-third-octave ranges are used.
To address these limitations, this study develops a modulation-feature-based preprocessing method that automatically extracts multiple carrier candidates from the full vibration PSD, applies narrowband bandpass filtering to each carrier, and uses the Hilbert transform to separately obtain amplitude and frequency modulation. For each narrowband signal, amplitude and frequency modulation spectra are computed, normalized, and multiplied to define a concurrency score representing frequencies where both modulation types appear strongly. Common AM/FM peaks across carriers are then tallied in modulation-frequency bins, and a fused metric combining vote counts and concurrency scores is used to determine the minimum effective modulation frequency that consistently recurs within the dataset. This frequency is interpreted as a representative joint modulation frequency arising from the machine structure and operating conditions, and twice its period is defined as the minimum segment length. Raw vibration signals are then segmented with 50% overlap using this minimum length to preserve modulation characteristics.
The proposed preprocessing and segment-design procedure was applied to the small-scale TELE, TILT, and VFD rotating machinery vibration datasets and compared with cases where segment length was arbitrarily chosen. When using raw-signal STFT or arbitrary segment lengths, some splits showed convergence to a trivial classifier or excessive overfitting to specific patterns. In contrast, applying the minimum segment length derived from the proposed modulation-feature-based method improved classification accuracy and evaluation metrics, while reducing performance variability across splits and enhancing training consistency. These results indicate that the proposed approach mitigates the expert dependency and band-selection issues inherent in traditional modulation analysis, provides a reproducible segment-design guideline accessible to non-experts, and establishes a principled minimum segmentation unit that increases the usable training instances while preserving physical interpretability, thereby improving the reliability of deep-learning-based fault diagnosis in small-scale rotating machinery vibration datasets.
