    • Convergence analysis of connection center evolution and faster clustering

Lee, Jaemin Sungkyunkwan University 2022

      RANK : 3903

Clustering is a subjective task, that is, several different results can be obtained from a single clustering hierarchy, depending on the observation scale. A local view of the data may necessitate more clusters, whereas a global view requires fewer clusters. It is, therefore, important to provide users with an appropriate clustering hierarchy and let them select the final clustering result based on their own observation scale. Thus, a new clustering method, named connection center evolution (CCE), was recently developed by Geng and Tang (2020). CCE provides gradual clustering results by iteratively merging cluster centers. However, theoretical evidence for its convergence is missing, and the center evolution requires a connectivity matrix of a significantly higher order as iterations proceed, resulting in higher computational costs. Accordingly, this study presents a convergence analysis of CCE using the properties of ergodic Markov chains and propose a faster algorithm using the enhanced connectivity graph derived from the convergence analysis. Empirical evidence from numerical experiments and theoretical proofs demonstrate the advantages of the proposed method.

As people often say “the eyes are the windows to the soul,” the eyes of a person betray a lot of cognitive information processed inside of one’s brain. By analyzing eye movements, not only can we predict what and where one pays attention, but also uncover the underlying decision-making process. We may even distinguish whether a person gazes over something with a particular purpose or not. In this study, we propose a gaze selection user interface that predicts binary decisions of a user when he or she is looking at a bi- stable figure called Necker cube as a visual trigger. The final goal of this study is to build a gaze selection tool with an eye-tracking interface at which a user can freely look uninterrupted, and select any bi-stable buttons at will without explicit actions taken. This interface will improve the current fixation-based gaze interaction systems which can not discern selection from navigation and selection without the fixation thresholds.

    • Monotonicity-incorporative neural network training for response surface methodology

Lee, Joohyung Sungkyunkwan University 2023

      RANK : 3903

In Response Surface Methodology (RSM), quadratic polynomial regression was typically used to approximate the relationship between input factors and one or more output responses. As a large amount of data becomes available from a system of interest, recent research works have attempted to employ neural network models to better estimate response surfaces. However, our intensive literature review found that none of those considered that training neural networks can go against the system’s inherent nature, even monotonicity between input and output, because the loss function of a neural network has several different local minima. This research accordingly claims that, in RSM, a care must be taken into account when training neural networks, and proposes the methods of training monotonicity-incorporative neural networks. Based on real-world and synthetic datasets, the significance of ensuring monotonicity is demonstrated when determining an optimal setting of input factors from a neural network surface.

    • Area under ROC curve as a learning objective for balanced and imbalanced data classification : development of new sphere classifiers

Park, Yeontark Sungkyunkwan University 2022

      RANK : 3887

Imbalanced data classification is a crucial task in the field of machine learning because abnormality, which is generally a point of interest, appears less frequently than normality in real-world systems. Learning classifiers from imbalanced data can be challenging due to the objective function of convectional classifiers being designed only for a balanced class distribution. To address this issue, this dissertation proposes new sphere-based classification methods, where the objective function is matched to imbalanced classification evaluation measure. The proposed methods, referred to as a learning objective controllable sphere-based classifier (LOCS), and a parameter-free sphere classifier (PFSC), are both designed to maximize the area under the receiver operating characteristic curve (AUC ROC) for performance evaluation of imbalanced learning. The AUC learning objective was adopted due to its tendency to approximate the accuracy as class distribution becomes balanced. Therefore, the proposed methods LOCS and PFSC appropriately perform a classification task for both imbalanced and balanced data. The LOCS constructs a classification model through single training, whereas existing cost-sensitive learning and resampling methods generally attempt various different hyperparameter settings. Additionally, the learning objective can be easily modified within the LOCS for each of the application domains, by setting different importance levels for positive and negative classes, respectively. Meanwhile, the second method PFSC proposes the use of the AUC for the construction and expansion of spheres for imbalanced data. Furthermore, it does not require any hyperparameters because spheres that are based on the AUC can consider both majority and minority in a balanced manner. Extensive numerical experiments based on real datasets from UCI Machine Learning Repository, with several investigational settings demonstrating the effectiveness and intended strengths of the proposed methods. LOCS (a learning objective controllable sphere-based classifier)와 PFSC (a parameter-free sphere classifier) 이다.

As machine learning continues to drive substantial improvements in manufacturing industries, one ongoing challenge is the temporal variability of data collected from industrial sites, which leads to performance degradation of the predictive models over time. This study addresses this issue by proposing a novel sustainable learning framework designed to monitor changes in data distribution and incorporate them into retraining decisions. The foundation of the proposed framework is a novel clustering method named ``Clustering by Peak Merging (CPM)''. The CPM method is designed to overcome the ``multi-peak problem'' that hound density peak clustering techniques, wherein multiple density peaks exist within a single cluster, thereby complicating the formation of discrete and meaningful clusters. CPM tackles this issue by identifying density valleys that mark the intersection between adjacent density peaks. Through this approach, the CPM algorithm generates an intuitive graph-based representation of clusters that accurately reflects the underlying structure within and between clusters. Building upon the CPM algorithm, the study introduces a Temporal Peak Management and Clustering System. This system uses the graph-based cluster representation generated by CPM to track changes in data distribution over time. It constantly evaluates the need for retraining local prediction models by detecting structural changes within each cluster, using a measurement of dissimilarity between clusters at different time stamps. The proposed sustainable learning framework not only adapts to evolving data patterns to maintain accurate and reliable predictions but also minimizes the resource-intensive traditional approach of complete model retraining. The framework was validated by applying it to an excimer laser annealing (ELA) process used in display manufacturing, which typically encounters challenges in maintaining the accuracy and usability of predictive models due to continuous changes in operation data stream. The study contributes to the field of clustering techniques by presenting a novel clustering algorithm and its application in a temporal management system. The aim is to effectively manage dynamic data variations, ensure the long-term validity of the predictive models, and enhance the efficiency of prediction processes in diverse applications. This dissertation is divided into five chapters, starting with a comprehensive overview of the density peak clustering technique, followed by a detailed explanation of the novel CPM algorithm. The subsequent chapter introduces the Temporal Peak Management and Clustering System, detailing its alignment with the research objective. The final chapter concludes the dissertation and provides directions for future research. This research serves as a promising solution for managing time-dependent data variations in manufacturing industries, thereby paving the way towards more reliable and efficient manufacturing processes.

    • Enhancing deep-learning-as-a-service with optimized architectures : a framework focused on service-level-objectives

      RANK : 3887

As artificial intelligence technology advances, the complexity of AI models increases, and the computing resources required by these models continue to grow. This results in cost issues when scaling AI services. Therefore, how to efficiently serve AI models has become a critically important problem, leading to research from various perspectives. Among various studies, research on model inference optimization applicable in on-premises environments has been gaining attention. Model inference optimization focuses on minimizing the latency of AI model services and maximizing the performance of models deployed on servers. To achieve this, it aims to determine the most efficient settings for various inference server parameters (such as max batch size, max queue delay time, model instances, dynamic inference, etc.). By optimally configuring the model service architecture, it is possible to enhance the performance of model inference services using the same models and hardware. However, there are limitations in configuring the optimal service architecture due to the long exploration time required. Moreover, solely utilizing quality metrics as the criteria for judging service architecture may lead to the problem of absence of objective criteria for selecting optimal configurations. Therefore, this study proposes a new integrated metric for determining the optimal service architecture and introduces a service architecture search framework to minimize exploration costs. In this paper, experiments are conducted in real-world service environments, demonstrating the effectiveness of the proposed integrated metric and framework in improving performance.

    • Gently sloped and extended classification margin for overconfidence relaxation of out-of-distribution samples

Kim, Taewook Sungkyunkwan University 2024

      RANK : 3887

Recently, machine learning models are expected to be capable of detecting out-of-distribution (OOD) samples for safe use. However, the existing OOD detection methods have limitations. Post-hoc calibration techniques used for OOD detection during the inference-phase suffer from slow inference and low OOD detection accuracy because pretrained classifiers were not originally designed for this task. Training phase methods require auxiliary data, entail slow training, and result in a decrease in classification accuracy. To address these issues, this paper proposes jointly employing discriminative representation learning through angular margin loss and weight regularization during neural network training. Angular margin loss extends the classification margin, whereas weight regularization ensures a gently sloped margin in the learned embedding space. By constructing a classification margin that is both gently sloped and enlarged, the proposed approach mitigates the overconfidence of OOD samples and overcomes the shortcomings of previous methods. The experimental results demonstrate that the proposed method outperforms state-of-the-art detectors in detecting OOD samples without any side effects.

    • Decision boundary-aware training of neural networks for imbalanced data classification

Yun, Jaesub Sungkyunkwan University 2023

      RANK : 3887

The problem of class imbalance in real-world datasets is a well-known challenge in machine learning and classification. Synthetic data generation methods have been used to address this issue, but they often fail to provide informative samples for proper model training. This dissertation presents two novel approaches to tackle the class imbalance problem. The first approach presents an end-to-end oversampling-classification approach, referred to as the imbalanced data-classifying generative adversarial network (ImbGAN). ImbGAN has a classifier-embedded structure within a GAN and consists of five components: a generator, a discriminator, a classifier, storage for misclassified minority class data, and storage for artificial minority class data. By iterative interaction with the embedded classifier, the first two components generate artificial minority class instances that are similar to minority class instances misclassified by the classifier. The misclassified and artificial minority class instances are stored in separate components and are updated as iterations proceed. The proposed method obtains the final classification model from a single learning process, unlike most artificial data generation methods for imbalanced data classification, which go through an additional process for training classifiers after artificial data generation. Numerical experiments based on tabular, image, and text datasets confirm that the proposed method outperforms well-known synthetic sampling methods. The second approach proposes a new synthetic data generation method that combines adversarial sample generation with a triplet loss method. This approach focuses on increasing the diversity in the minority class while preserving the integrity of the decision boundary. The proposed method optimizes a loss function that reduces triplet loss, which is equivalent to maximizing the area under the receiver operating characteristic curve under specific conditions. We present a model training approach to further improve the generalization of the model to minority classes by providing a diverse set of synthetic samples provided by triplet adversarial sampling. The method is evaluated on several imbalanced benchmark tasks and compared to state-of-the-art techniques, demonstrating its effectiveness in delivering even better performance. Overall, the proposed methods in this dissertation demonstrate the new and effective solutions for addressing the class imbalance problem in machine learning and classification. The methods can be applied to various domains, and they provide new and promising directions for future research in this area.

    • Diffraction-limited THz time-domain spectroscopy to investigate electrodynamics of correlated electron systems

Jeong Woo Han

      RANK : 3887

Terahertz (THz) spectroscopy has attracted much attention because it is the unique tool for giving information regarding the carrier dynamics. Although THz spectroscopy is now stepping into a mature stage, some of technical difficulties still remain. In this dissertation, we present the limitations of current conventional THz spectroscopy technique and propose the way for overcoming these drawbacks. And, using our proposed the new-technique of THz spectroscopy, we provide the carrier dynamics of n-InAs and Tb-doped Sr2IrO4. First, we explore the propagation properties of THz light itself. We generate the THz wave on the surface of an unbiased GaAs crystal by illuminating femtosecond laser pulses with a 45° incidence angle, and investigate its propagation properties comprehensively both in a near-field and in a far-field zone by performing a knife-edge scan measurement. We observe a crossover from the Gaussian beam in the near-field zone to the anisotropic non-Gaussian beam in the far-field zone. In the near-field zone, i.e. 540 mm away from the generation point, we found that the beam simply takes a Gaussian shape of which width follows well a behavior predicted by a paraxial wave equation. In the far-field zone, on the other hand, it takes a highly anisotropic shape; whereas the beam profile maintains a Gaussian shape along the normal to the plane of incidence, it takes satellite peak structures along the direction in parallel to the plane of incidence. From the comparison with simulation results obtained by using a dipole radiation model, we demonstrated that this irregular beam pattern is attributed to the phase retardation of the transient dipoles which leads to the interference of the waves in the far-field zone. Also, we found that this consideration can be applied for a comprehensive understanding of THz beam profiles obtained in several different configurations. Second, we investigate a free space propagation of a truncated THz beam created by a partial reflection from a small-sized metallic reflector. By using THz time-domain spectroscopy, we obtain both magnitude and phase spectra of a clipped THz beam after its propagation by about 10 cm. Compared to a fully-reflected THz beam, a gradual and a large amount of the reduction are founded in magnitude spectra at the THz frequency region (0.2 – 1.3 THz) as turning into the partially reflected beam. In contrast, drastic change is observed in phase spectra. To model the free space propagation of the truncated Gaussian beam, we decompose it using a super-Gaussian and several other Gaussian beams with phase factors which is determined by the refractive index difference of an interface between the metallic reflector and the just right faced medium. From this, we could successfully reproduce the experimental results, i.e., the modulations observed in both magnitude and phase spectra. We utilize such factors to recover the magnitude and phases spectra which the large-enough sample is supposed to have, and retrieve the absolute values of optical constants reasonably well for the InAs of which size is smaller than the beam size. Third, we investigate temperature-dependent carrier dynamics of the InAs crystal by using reflection-type terahertz time-domain spectroscopy particularly with a recently developed emitter-sample hybrid structure. We successfully obtain the optical conductivity in a THz frequency of the bulk InAs whose dc-conductivity is in the range of 100-150 W-1cm-1.We find that both real and imaginary parts of optical conductivity can be fit well with the simple Drude model, and the free carrier density and the scattering rate obtained from the fitting are in good agreement with corresponding values obtained by using other techniques, such as the Hall measurement and the dc-resistivity measurement. These results clearly demonstrate that the proposed technique adopting the emitter-sample hybrid structure can be exploited to determine temperature-dependent optical constants in a reflection geometry and hence to investigate electrodynamics of bulk metallic systems. Finally, we observe that the temperature dependent carrier dynamics of the bulk iridate Sr2(Ir,Tb)O4 by means of the terahertz time-domain spectroscopy in the reflection geometry that can be corroborated by the bandstructure calculated from the tight-binding method with the adjusted strength of the Jeff=1/2 spin current hidden order. These observations suggest that the quasi-2D Dirac semimetallic phase can emerge in the tiny doped-Sr2IrO4 regardless of the doping type, providing the new knowledge for the high-temperature superconducting phase in connection with the Dirac fermion, which resembles the attempt in the cuprate physics.

    • Investigation of thermal transport in 2-Dimensional Van der Waals Materials

      RANK : 3887

Van der waals materials are receiving much interest due to its two dimensional nature and availability to make heterostructures and quasicrystals. TMPS3 (TM=Fe, Ni, Mn) group, which is antiferromagnetic vdW materials, can act as magnetic candidate for studying 2-dimensional physics. In this work, we measured the anisotropic thermal conductivity of TMPS3 materials with beam size dependent time-domain thermoreflectance method. Out-of-plane thermal conductivity of TMPS3 materials displays significantly low value when compared to graphene and TMD, and the thermal conductivity increased in the order of TMPS3, TMD and graphite. By examining the temperature–dependence, we conclude that effective boundary caused by stacking fault of van der Waals layer act as main scattering channel in out-of-plane thermal conduction in van der Waals materials we investigated. In plane thermal conductivity of TMPS3 at 300 K is similar with TMD material which shows highly anisotropic behavior. We measured thermal conductance of 2 to 13 layer MnPS3 which is lying between metal and SiO2 substrate. Layer dependent thermal conductance of MnPS3 shows constant increase in 2 to more than 10 layers which is contradicting with the understandings from other van der Waals materials.
