With the deep integration of IoT technology and intelligent transportation systems, the Internet of Vehicles (IoV) significantly enhances traffic efficiency and driving safety through real-time data exchange between vehicles, Roadside Units (RSUs), and the cloud. However, IoV faces severe risks of privacy breaches and malicious attacks during data sharing, while traditional centralized machine learning—requiring raw data uploads—further exacerbates the conflict between privacy protection and model security. Federated Learning (FL), a distributed learning framework that enables vehicles to train models locally and upload only parameters, offers a novel solution to this dilemma. Nevertheless, the chain-like architecture of vehicle networks leaves federated learning vulnerable to chain-based malicious attacks such as data poisoning and model inversion.
This paper conducts a systematic investigation into federated learning-based counterattack techniques for connected vehicles. It first reviews the technical foundations of vehicle networking and federated learning, clarifying the application advantages and security challenges of federated learning in this context. The study categorizes and analyzes typical attack types in connected vehicle federated learning scenarios—including data poisoning, model inversion, and member inference—and constructs formal attack models. Subsequently, it delves into key counterattack technologies such as privacy protection mechanisms (e.g., differential privacy and homomorphic encryption), defense strategies (e.g., cosine similarity-based malicious detection and parameter substitution), and model robustness enhancement methods (e.g., gradient clipping). Experimental evaluations across four datasets—MNIST, CIFAR-10, UNSW-NB15, and Car-Hacking—compare the performance of proposed techniques versus the traditional Federated Average (FedAvg) model, measuring differences in accuracy, defense success rates, and communication overhead under varying proportions of malicious nodes (0.1–0.5). Experimental results demonstrate that the defense scheme combining parameter substitution and multi-chain parallel transmission achieves model accuracies of 92.3% on the MNIST dataset and 78.5% on the CIFAR-10 dataset when the proportion of malicious nodes is 0.4, representing improvements of 15.6% and 12.8% over FedAvg respectively, while achieving a malicious node detection rate of 91.2%. On the UNSW-NB15 and Car-Hacking datasets, the scheme maintains detection accuracies of 90.5% and 92.3%, with detection rates exceeding 88% for three types of vehicle attacks: DoS, Fuzzy, and Spoofing. This research provides technical references for the secure deployment of federated learning systems in connected vehicles and holds significant importance for advancing the secure development of intelligent transportation systems.
