    집단 거동(collective behavior)은 개별 개체들이 더 큰 스케일에서 정렬된 특정 패턴을 보이거나, 개별 개체 수준에서 수행할 수 없는 행동을 자발적으로 형성하는 현상이다. 이때 개별 개체들은 중앙 제어 없이 국소적인 상호작용 혹은 주변 환경에 대한 반응만으로 집단 거동을 형성한다. 이러한 현상은 세포 이동, 세균 군집, 새 떼와 물고기 떼, 사회성 곤충 집단, 보행자 흐름, 군중 이동 등 생물과 공학 시스템 전반에서 폭넓게 관찰된다. 이러한 거동은 반발력, 응집력, 정렬 규칙과 같이 비교적 간단한 규칙을 통해 재현될 수 있음이 선행연구를 통해 보여져 왔다. 최근에는 생물의 대규모 궤적 데이터 축적과 함께 기계 학습 기법이 도입되어 상호작용의 특성을 데이터로부터 추정하거나 행동 분류를 구분하고, 강화학습을 통해 집단의 결집을 유지하는 전략을 추론하는 등 인공지능을 활용한 다양한 접근이 이뤄지고 있다. 하지만 이러한 접근의 상당수는 정상 상태에 도달한 패턴을 기술하는 데 한정되어 있고, 무질서한 초기 상태로부터 집단 패턴을 유도할 수 있는 상호작용 법칙을 직접적으로 규명 및 설계하기는 어렵다.

    한편, 모든 생물학적 집단 거동이 앞서 정리한 단순한 개체 간 거리 기반 상호작용만으로 설명되지는 않는다. 사회성 곤충의 경우 개체 간 정보 전달이 주로 페로몬이나 발자국과 같은 화학 물질이 형성하는 농도장(concentration field)을 매개로 이루어지며, 개체는 이 농도와 구배를 감지하여 방향 전환과 속도 조절을 수행한다.이때 움직이는 개체들의 궤적은 실험적으로 관측할 수 있으나, 농도장 자체는 직접 측정하기 어렵고, 단순한 개체 간 상호작용의 추정만으로는 실제 생물의 반응 함수를 복원하는 데 한계가 있다. 따라서 집단 거동의 동역학을 해석하고 공학적으로 활용하기 위해서는 물리적으로 해석 가능한 형태의 상호작용 및 반응 함수를 추론하고, 상호작용 기반 집단 운동과 장을 매개로 하는 집단 거동을 하나의 통합된 틀에서 다룰 수 있는 방법론이 요구된다. 본 연구은 이러한 문제의식에서 출발하여, 물리정보 신경망(physics-informed neural network)을 기반으로 자기추진 입자(self-propelled particles)의 상호작용 법칙을 집단 패턴의 특징 혹은 궤적 데이터로부터 학습하고, 나아가 화학 발자국을 매개로 반응하는 개미의 행동 반응과 농도장을 동시에 추론함으로써, 집단 거동의 이해와 설계 사이의 간극을 줄이는 것을 목표로 한다.

    먼저, 집단 거동을 보이는 개체들의 상호작용 법칙을 규명하기 위해, 상호작용하는 힘을 거리 및 상대 속도에 대한 다항급수(polynomial series)로 표현하고, 그 계수와 지수를 학습하는 인공신경망 기반 프레임워크를 구축하였다. 상미분방정식으로 기술되는 운동 방정식을 손실 함수에 직접 포함하는 물리정보 손실 함수를 설계함으로써, 전체 개체의 궤적 정보가 주어지지 않아도 표준화된 각운동량(normalized angular momentum), 질서 변수(order parameter), 평균 반지름, 전체 군집 크기와 같은 거시적 특징만으로도 유효한 미시적 상호작용 법칙을 복원할 수 있음을 보였다. 학습된 상호작용 함수는 무질서한 초기 조건에 놓인 개체들이 다양한 집단 거동 패턴을 형성하도록 하였으며, 패턴 형성 시간과 기하학적 특성을 제어하는 것이 가능함을 보였다. 또한 잡음(noise), 장애물, 제한된 공간과 같은 실제와 유사한 조건에서도 여전히 집단 거동이 발생하는 높은 견고성을 확인하였다. 나아가 실제 비둘기 무리 궤적에 프레임워크를 적용하여 학습함으로써 비등방성 시야로 특징지어지는 상호작용 메커니즘을 추정하였고, 이를 기반으로 한 시뮬레이션이 실험에서 관찰된 무리(flocking) 구조와 높은 정렬 상태를 재현함을 확인하였다.

    다음으로, 일본왕개미(Japanese carpenter ant, \textit{Camponotus japonicus})의 탐색 및 적응화 실험에 확장된 프레임워크를 적용하여, 집단 거동을 유도하는 개미 궤적에 따른 농도장과 행동 반응 함수를 동시에 추론하였다. 개미의 궤적, 발자국 농도 분포, 개미의 행동 반응 각각을 학습할 수 있는 인공신경망을 통합하여 구성하고, 발자국의 생성과 소멸을 기술하는 미분방정식을 손실 함수에 포함함으로써, 실험 데이터에 부합하는 개미의 행동 반응 함수를 정량적으로 도출하였다. 그 결과, 개미는 발자국 농도장의 법선 방향 구배가 약한 경우에 대해서는 강한 회피 성향을 보이고, 높은 농도 구배에서만 약한 접근 성향을 보였다. 나아가 이러한 반응 함수를 모사하여 시뮬레이션한 결과, 회피 반응이 없고 잡음만 존재하는 경우에는 브라운 운동(Brownian motion)이나 탄도 운동(ballistic motion)과 같은 확산 양상이 나타나는 반면, 약한 구배에 대한 회피가 도입되면 개미의 이동이 초확산적(superdiffusive)인 특징을 보이며 집단 응집(aggregation) 확률이 크게 증가함을 확인하였다. 또한 반응 함수의 강도(intensity)와 임계값(threshold)을 조절하여 분석한 결과, 응집 확률은 회피 임계값에 가장 민감하며, 회피 강도는 실험 시점의 주변 온도와 상관관계를 보인다는 점도 함께 확인하였다.

    본 연구는 개체 간 상호작용과 농도장 매개 반응이라는 두 가지 대표적인 집단 거동 원리에 대해, 인공신경망을 이용한 정량적인 메커니즘 함수 추론, 설계 프레임워크를 제시하였다. 나아가 이를 활용해 집단 거동의 물리적, 생물학적 이해를 심화시키는 동시에 다양한 과학, 공학 시스템으로의 응용이 가능한 집단 거동 메커니즘을 규명하였다. 특히 제안된 프레임워크는 완전한 개체 궤적 대신 제한된 거시적 특징이나 부분적인 실험 데이터만으로도 메커니즘 규명이 가능하고, 목표하는 집단 패턴을 능동적으로 설계 및 제어할 수 있다는 점에서 기존의 모델링 중심의 접근과 구별되는 가치를 갖는다. 나아가 본 연구에서 제시한 방법론은 비둘기 무리와 개미 집단이라는 특정 사례를 넘어, 다양한 사회성 곤충 집단, 세포, 미생물 집단, 능동 입자 유동, 군집 로봇 시스템 등으로 자연스럽게 확장될 수 있으며, 향후 3차원 환경, 이질적인 개체 분포, 다중 감각, 다중 장(multi-field) 조건을 포함하는 보다 복잡한 집단 거동의 분석과 제어에도 유용한 기반을 제공할 것이다.

    Collective behaviors in natural and artificial systems emerge from local sensing, interactions, and responses to external fields. Specifically, interactions among individuals within complex systems generate collective motion that exhibits coherent, coordinated, and often self-organized global structures. In addition, responses to trail-based chemical cues, as observed in social insects, induce cooperative activity. However, despite their ubiquity, the mechanisms that govern and enable control of such collective behaviors remain elusive, as they are difficult to quantify and generalize due to the nonlinearity and high dimensionality of these systems. These challenges limit their practical application across both natural and engineered systems. In this study, two fundamental mechanisms underlying collective behavior were investigated: (i) interaction-driven collective motion, as seen in birds and fish, and (ii) field-mediated coordination, as observed in ants responding to environmental chemical cues. First, a framework based on artificial neural networks was developed to learn inter-agent interaction laws that guide groups of agents toward prescribed global structures, as well as the behavioral responses of ants that communicate through ground-deposited chemical fields. Within this framework, physics-informed loss functions were employed to identify interaction and response mechanisms. Second, interaction laws corresponding to specific intended collective behaviors---including ordered states, ring, clumps, mill, and flock---were uncovered, enabling active manipulation of their geometric and dynamical characteristics. The learned laws demonstrated robust generalization across stochastic disturbances, obstacles, and confinement conditions. Application of this framework to pigeon flock trajectories further revealed interaction mechanisms characterized by anisotropic perception and directional fields of view, and simulations based on the trained models successfully reproduced the observed flocking patterns of pigeons. Third, experiments on Japanese carpenter ants were analyzed using a modified physics-informed neural network approach, revealing a graded (nonbinary) behavioral response to chemical footprints: a pronounced aversion to weak normal gradients in the footprint field and a weak approach bias at high concentration gradients. Comparison between experimental and simulated results under different parameter variations of the behavioral response indicated that aggregation is most sensitive to the aversion threshold, which induces superdiffusive movement, and that the intensity of aversion correlated with the ambient temperature at the time of collection. Together, these findings demonstrated that collective behaviors, once difficult to quantify, can now be captured and interpreted through artificial neural network based frameworks. By unraveling the mechanisms underlying both interaction-driven and field-mediated coordination, this work deepens our physical and biological understanding of collective dynamics and broadens the potential for their application across a wide range of scientific and engineering systems.
