Accurate quantification of terrestrial carbon fluxes is essential for understanding the global carbon cycle and informing climate change mitigation strategies. Although recent advances in satellite remote sensing have enabled global-scale monitoring of gross primary production (GPP), existing modeling approaches remain limited. Traditional process-based models, such as Light Use Efficiency (LUE) models, rely on static parameters prescribed by plant functional types (PFTs) and fail to represent rapid physiological responses to environmental variability, while purely data-driven machine learning (ML) models often lack biophysical interpretability and robustness under extreme climate conditions.
Here, we introduce the CArbon Simulator from Space (CASS), a hybrid diagnostic framework that integrates the physiological structure of LUE models with the adaptive flexibility of machine learning. CASS employs a gradient boosting machine (XGBoost) to dynamically estimate hourly LUE as a function of environmental drivers, which is subsequently embedded within a biophysical formulation of GPP (GPP = LUE × APAR). The model was trained using observations from the global FLUXNET eddy covariance network to ensure generalizability across biomes. For regional application over the Korean Peninsula, CASS assimilated high-frequency photosynthetically active radiation from the Himawari-8/9 geostationary satellites together with high-resolution (hourly) meteorological reanalysis data from the Korea Meteorological Administration.
Model evaluation at the Taehwa Broadleaf Forest (TBK) flux tower site demonstrated that CASS outperformed both static LUE models and ML models that directly predict GPP, achieving the highest agreement with observations (R² = 0.805). Notably, CASS reproduced realistic diurnal GPP dynamics under low-light conditions and extreme heat (>30 °C), where purely data-driven models showed degraded performance.
At the national scale, CASS estimated the mean annual terrestrial carbon uptake of South Korea to range from 89.74 MtC in 2020 to 97.43 MtC in 2024, and enabled diagnostic analyses of ecosystem responses to climate extreme. During the 2018 heatwave, pronounced regional contrasts were observed, with positive GPP anomalies in Gangwon-do and substantial declines in Gyeongsangbuk-do. Further analysis identified a critical physiological temperature threshold of 31.2 °C, beyond which GPP decreased at a rate of 0.48 μmol CO₂ m⁻² s⁻¹ °C⁻¹, highlighting the vulnerability of temperate forest ecosystems to extreme heat.
Overall, this study establishes CASS as a robust, quasi-real-time diagnostic framework for monitoring terrestrial carbon dynamics from space. By adopting a hybrid modeling strategy that integrates machine learning with biophysical constraints, CASS reduces the occurrence of physically implausible estimates that often arise in purely data-driven approaches, while maintaining high predictive performance. The quasi-real-time capability of the framework further enables timely tracking of ecosystem carbon uptake, providing a practical basis for informing forest management policies, including the formulation, monitoring, and evaluation of Nature-based Solutions (NbS) targets under changing climate conditions. As additional high-frequency satellite observations and emerging data streams are integrated, CASS is expected to further enhance its accuracy and diagnostic value for assessing ecosystem function and resilience in an era of increasing climate variability.
