구리는 우수한 전기적·열적 전도도와 높은 가공성을 바탕으로 반도체 및 패키징 산업에서 핵심 금속으로 자리 잡았다. 특히 전해도금 공정은 다양한 기판 위에 고품질 구리 구조를 빠르고 경제적으로 형성할 수 있어 널리 활용되고 있다. 구리 전해도금은 미세 패터닝과 금속 박막 형성에 폭넓게 적용되며, 특히 TSV(Through-Silicon Via)와 같이 종횡비가 높은 구조에서 3차원 적층을 가능하게 하는 핵심 기술로 기능한다. 전해도금 과정은 Cu²⁺ 이온의 물질 전달 및 전하 전달을 통한 환원 반응으로 이루어지며, 공정 파라미터 조절을 통해 원하는 구조적·전기적 특성을 쉽게 구현할 수 있다. 또한 유기 첨가제를 도입하면 미세 구조 내부의 전류 분포를 정밀하게 제어할 수 있어 고종횡비 패턴에서 bottom-up 충전을 가능하게 한다. 가속제, 억제제, 레벨러와 같은 첨가제들은 각각 중간체 안정화, 표면 차단, 전단 속도 의존적 흡착 등의 메커니즘을 통해 도금 속도와 선택성을 조절한다.
본 연구의 첫 번째 목적은 레벨러의 분자 구조, 특히 말단 벤질기 수가 전기화학적 흡착 및 억제 거동에 어떠한 영향을 미치는지 규명하는 것이다. 벤질기 수가 다른 세 종류의 레벨러(Lev B0, B2, B4)를 합성하여 단일 첨가제 조건 및 삼중 첨가제 조건에서 LSV(linear sweep voltammetry)를 이용해 평가하였다. 정지(0 rpm) 및 고교반(1000 rpm) 조건 모두에서 Lev B2와 B4는 Lev B0에 비해 상부 표면에서 훨씬 강한 억제 효과를 나타냈다. 특히 Lev B4의 억제 전위는 매우 강한 표면 억제를 의미하였으며, 상부 억제를 유지하면서 TSV 내부에서는 void-free bottom-up filling이 가능함을 보여주었다. 이러한 결과는 벤질기의 π-전자 구조가 구리 표면과의 상호작용을 강화하여 고종횡비 구조에서 선택적 전착 제어를 가능하게 하는 효과적인 메커니즘임을 시사한다.
두 번째 목적은 머신러닝을 적용하여 구리 전해도금에 사용되는 세 가지 핵심 첨가제의 농도를 정확하고 동시에 측정하는 것이다. 기존 CVS 기반 분석법은 단일 첨가제 분석에만 적합하며 단계적 주입 및 선형 보정이 필요해 분석 시간이 길고 극단 농도에서는 정확도가 낮아진다는 한계가 있다. 본 연구에서는 cyclic voltammetric stripping(CVS) 에서 얻은 전류–전위 데이터를 입력으로 사용하여 KNN, Linear, Random Forest, ANN 모델을 학습시켜 세 첨가제 농도를 동시에 예측하였다. 이 중 ANN 모델은 비선형성이 큰 데이터 구간에서도 안정적인 예측성능을 보였다.
추가로, 예기치 않은 농도 변화 상황을 모사하기 위해 모델들의 외삽 (Extrapolation) 성능도 평가하였다. 모델은 제한된 농도 구간(0–50%, 0–70%, 0–90%)만을 학습한 뒤 전체 구간(0–100%)에서 시험하였다. KNN과 RF는 학습 구간 근처에서는 정확했으나, LR은 선형 영역에서만 우수한 성능을 보였다. 반면 ANN은 학습 범위를 벗어난 농도에서도 높은 외삽 성능을 유지하며, 실시간 첨가제 모니터링에 가장 적합한 모델임을 확인하였다.
요약하면, 본 연구는 (1) 레벨러 말단 벤질기 수가 강력한 표면 억제를 유도하여 TSV 완전 충전을 가능하게 함을 실험적으로 확인하고, (2) CV 데이터를 기반으로 한 머신러닝을 통해 다중 첨가제 동시 분석이 가능함을 입증했으며, (3) 학습 범위를 넘어서는 농도 조건에서도 예측 가능한 외삽 성능을 검증하여 실제 공정 제어 시스템에의 적용 가능성을 제시하였다.

Copper has become a key metal in semiconductor and packaging industries due to its excellent electrical and thermal conductivity, as well as high processability. In particular, electroplating enables the rapid and cost-effective formation of high-quality copper structures on various substrates. Copper electroplating is widely utilized in fine patterning and metal film formation, especially in high aspect ratio structures such as through-silicon vias (TSVs), where it plays a critical role in enabling 3D integration. The electroplating process involves the reduction of Cu²⁺ ions through mass and charge transfer steps, and its process parameters can be easily tuned to achieve desirable structural and electrical properties. The addition of organic additives allows for precise control of current distribution inside microstructures, enabling bottom-up filling in high aspect ratio geometries. Common additives include accelerators, suppressors, and levelers, each influencing deposition rate and selectivity via intermediate stabilization, surface blocking, and shear rate-dependent adsorption mechanisms, respectively.
The first objective of this study is to investigate how the molecular structure of levelers, particularly the number of terminal benzyl groups, affects their electrochemical adsorption and suppression behavior. Three types of levelers (Lev B0, B2, B4) with varying numbers of benzyl groups were synthesized and evaluated under single- and three-additive conditions using linear sweep voltammetry (LSV). Under both static (0 rpm) and high-convection (1000 rpm) conditions, Lev B2 and B4 showed significantly enhanced suppression at the top surface compared to Lev B0. The inhibition potential of Lev B4 indicated strong surface suppression, maintaining top-side inhibition and enabling void-free bottom-up filling in TSVs. These results suggest that the π-electron structure of the benzyl group promotes strong interaction with the copper surface, providing an effective mechanism for selective deposition control in high aspect ratio structures.
The second objective is to apply machine learning to accurately and simultaneously quantify the concentrations of three key additives used in copper electroplating. Conventional CVS-based methods are limited to analyzing single additives and require stepwise additions and linear calibration, which increase analysis time and reduce accuracy at extreme concentrations. In this study, current–potential data from cyclic voltammetry were used as input to train machine learning models, including KNN, Linear, Random Forest, and ANN, to predict concentrations of all three additives. Among these, the ANN model demonstrated stable performance even in highly nonlinear regions.
Furthermore, the extrapolation capabilities of the models were evaluated to simulate unexpected concentration changes beyond the training range. Models were trained on restricted concentration ranges (0–50%, 0–70%, 0–90%) and tested across the full range (0–100%). While KNN and Random Forest showed accurate predictions near the training range, Linear performed well only in linear regimes. ANN exhibited robust extrapolation performance across untrained concentrations, suggesting it is the most suitable model for real-time additive monitoring.
In summary, this study (1) experimentally confirmed that the number of terminal benzyl groups in levelers induces strong surface suppression enabling complete TSV filling, (2) demonstrated the feasibility of simultaneous multi-additive analysis using machine learning based on CV data, and (3) verified the potential for extrapolative prediction beyond training ranges, supporting practical deployment in process control systems.
