    고장 탐지 및 진단(Fault Detection and Diagnosis, FDD)은 HVAC 시스템에서 운전 이상을 탐지하고, 이상이 발생한 구성 요소와 고장 상태를 추정하기 위한 핵심 기능이다. 그러나 HVAC 시스템은 구성 요소 간 상호작용이 복잡하여 특정 구성 요소에 고장이 발생하더라도 그 영향이 여러 하위 시스템으로 전파되는 과정에서 센서 데이터에 직접적으로 나타나지 않을 수 있다. 특히 외기댐퍼나 냉수코일 밸브와 같은 구성 요소의 고장은 보상 제어로 인해 영향이 상쇄되면, 온도와 같은 센서의 측정값만으로는 탐지가 어려워진다. 또한 실제 운전 데이터에서는 정상 운전 데이터가 대부분을 차지하고 고장 데이터는 충분히 확보되기 어려운 경우가 많아, 데이터 불균형으로 인해 진단 모델의 학습과 일반화에 제약이 따른다. 이러한 조건에서는 측정값만으로 고장 특성이 뚜렷하게 분리되지 않으며, 편향된 데이터로는 모델이 다양한 고장 양상을 충분히 학습하기도 어렵다. 따라서 단순한 고장 탐지나 알람 수준을 넘어 고장 상태를 설명력 있게 추정할 수 있는 진단 정보가 요구되며, 이를 위해 비선형 동특성을 포착하면서도 해석과 역추정이 용이한 선형 구조를 갖춘 FDD 접근이 필요하다.
    이 문제를 해결하기 위해 본 연구는 Koopman 연산자 이론을 활용한 모델 기반 FDD 프레임워크를 제안한다. 제안된 프레임워크는 정상 운전 데이터만으로 학습된 KoopmanVAE를 사용해 비선형 HVAC 동특성을 관측가능공간으로 사상하고, 해당 공간에서 시스템의 거동을 선형 모델로 근사한다. 정상 운전 조건에서 공급공기온도, 혼합공기온도, 환기온도에 대한 예측 성능은 MAE가 각각 0.13°C, 0.12°C, 0.06°C로 나타났으며, cvRMSE는 2.15%, 0.94%, 0.85%로 평가되었다. 이러한 예측 성능은 잔차 기반 고장 탐지를 위한 기준 모델로서 학습된 선형 모델의 타당성을 뒷받침한다. 이를 바탕으로 고장 탐지는 관측가능공간에서 예측값과 측정값의 궤적 간 잔차를 기반으로 수행되며, 학습된 Koopman 선형 구조를 이용한 역추정을 통해 액추에이터 수준의 정량적 진단이 가능하다.

    나아가 본 연구는 KoopmanVAE 기반 FDD 프레임워크의 활용 가능성을 검토하기 위해, 이를 FDD–FDI 및 입력 보정 절차에 연계한 개념 검증을 위한 사례 연구를 추가로 수행하였다.     Heating, ventilation, and air conditioning (HVAC) systems exhibit complex control interactions, where actuator faults propagate through subsystems and may not be directly reflected in sensor data. Malfunctions in components such as outdoor-air dampers and cooling-coil valves may therefore remain undetected when their effects are masked by compensatory control actions, posing a challenge for fault detection and diagnosis (FDD) methods that rely solely on measurement variables such as temperature. Because these behaviors are inherently nonlinear and arise from coupled control actions, an FDD approach is needed that can capture nonlinear system dynamics while retaining a linear structure that is amenable to analysis and inverse estimation.
    To address this problem, this thesis proposes a model-based FDD framework grounded in Koopman operator theory. The framework uses a Koopman variational autoencoder (KoopmanVAE) model trained exclusively on fault-free data to lift nonlinear HVAC dynamics into an observable space where the system evolution is approximated as linear. Under normal conditions, the model achieved mean absolute errors (MAEs) of 0.13°C, 0.12°C, and 0.06°C, and coefficients of variation of the root mean squared error (cvRMSE) of 2.15%, 0.94%, and 0.85% for the supply air temperature (SAT), mixed air temperature (MAT), and return air temperature (RAT), respectively, indicating that the learned linear model provides an accurate basis for prediction. Fault detection is based on residuals between predicted and measured trajectories in the observable space, and actuator-level diagnosis is enabled via inverse estimation with the learned Koopman operator.
    The proposed method was evaluated on air handling unit (AHU) data with three stuck-fault scenarios: an outdoor-air damper stuck at 75% and cooling-coil valves stuck at 75% and 50%. The framework detected abnormal behaviors even when temperature differences were minimal, including a case in which the SAT remained close to its setpoint owing to compensatory cooling-coil control. In addition, the model estimated actuator positions of 0.77, 0.57, and 0.42 for the three fault cases, closely matching the injected fault conditions without retraining. These results show that the KoopmanVAE model can capture system dynamics from variable trajectories in the observable space and provide interpretable, quantitative diagnostics at the actuator level using only normal-operation data.
    This thesis presents an interpretable approach to FDD in HVAC systems by capturing nonlinear dynamics through linearized modeling in the observable space. By combining trajectory-based residual analysis with Koopman-based inverse estimation of actuator states, the proposed framework enables FDD across heterogeneous actuator fault scenarios using only normal operation data. In a proof-of-concept extension, a bilinear KoopmanVAE model was further embedded in a combined FDD–FDI and input-correction scheme for an outdoor-air damper stuck-fault scenario in a DOE Large Office EnergyPlus simulation. In that application, inverse-estimated damper states replaced the faulty actuator input in the prediction model, isolating the outdoor-air damper as the fault source and substantially recovering prediction performance during the fault period (e.g., improving R-squared from negative values toward 0.9–1.0 and reducing NMBE from above 20% to below about 3–4%) without additional retraining. Taken together, these findings demonstrate that Koopman-based observable-space modeling provides a practical and scalable FDD framework for HVAC systems and that its actuator-level diagnostic information can also be directly reused in downstream FDI and fault-tolerant prediction schemes.
