에너지 빈곤은 소득 부족, 주거 환경, 에너지 가격, 기후 조건, 그리고 가구의 행동 특성이 복합적으로 작용하는 다차원적 사회 문제이며 기후변화와 에너지 전환이 가속화됨에 따라 그 중요성이 더욱 커지고 있다. 특히 계절적 기온 변동이 크고 지역 간 기후·주거 여건의 이질성이 뚜렷한 한국의 경우, 에너지 빈곤은 단일 지표나 균일한 정책 설계로는 충분히 설명하거나 완화하기 어려운 구조적 특성을 지닌다. 그럼에도 불구하고 기존 연구는 주로 연간 단위의 소득 중심 지표나 국가 평균 수준의 분석에 머물러 지역별·계절별·도시 내부의 미시적 취약성 구조를 충분히 포착하지 못해 왔다.
이 논문은 이러한 한계를 극복하기 위해 전국 규모의 머신러닝 분석과 대도시 내부의 공간회귀 분석을 결합한 이중 분석 전략을 통해 한국의 에너지 빈곤 구조를 다층적으로 규명하는 것을 목표로 한다. 구체적으로 전국 분석에서는 2018–2022년 가구 단위 월별 자료를 활용하여 에너지 빈곤을 예측하고 지역별·계절별·행동 요인이 취약성 메커니즘에 어떻게 작용하는지를 머신러닝과 SHAP 기법을 통해 분석하였다. 이어서 서울을 사례로 한 대도시 분석에서는 행정동 단위의 공간자료를 활용하여 에너지 빈곤 취약성이 도시 내부에서 어떻게 공간적으로 집중·분화되는지를 공간회귀모형을 통해 규명하였다.
전국 분석 결과, 에너지 빈곤은 소득 요인만으로 설명되지 않으며 소득을 제외한 경우 난방연료 유형, 고용 상태, 그리고 난방도일수가 핵심 결정요인으로 작용함이 확인되었다. 지역별 분석에서 군집 분석을 통해 전국을 다섯 개의 유형으로 구분함으로써 에너지 빈곤이 지역별 주거 구조, 에너지 인프라, 기후 조건의 결합에 의해 상이한 형태로 나타남을 밝혔다. 또한, 계절별 분석에서는 냉방 관련 변수에 비해 난방 관련 구조적 요인의 영향이 연중 지속적으로 크게 나타나 한국의 에너지 빈곤이 계절을 초월한 난방 중심의 구조적 취약성에 기반하고 있음을 보여준다. 여름철에는 에너지 빈곤 취약성이 주로 사회경제적 제약에 의해 형성되는 반면 겨울철에는 주택의 물리적 특성 같은 요인들을 통해 에너지 빈곤이 더욱 심화된다. 행동 요인 분석 결과, 전기요금 확인 여부와 에너지효율등급 인식은 전체 변수 중 중간 수준의 중요도를 가지는 의미 있는 설명 변수로 나타났다. 그러나 소득·주거·기후와 같은 구조적 요인을 대체할 수 있는 독립적 완화 수단이라기보다는 가구가 보유한 인지적·재정적 잔여 역량을 반영하는 맥락적 지표로 기능함이 확인되었다. 특히 이중위험 가구의 경우, 행동 조정의 여지가 구조적으로 제한되어 있음을 보여준다.
서울을 대상으로 한 공간 분석 결과, 에너지 빈곤 취약성은 도시 전반에 균질하게 분포하지 않는 것으로 나타났다. 1인 가구 비율, 저소득 가구 비율, 주거 면적, 냉방쉼터와 온열쉼터는 전 지역에서 일관된 방향으로 작용하는 공간적으로 동질적인 요인으로 확인되었다. 반면, 노인가구 비율, 아파트 비율, 인구 밀도, 공원 비율 변수는 지역에 따라 효과의 크기와 방향이 달라지는 공간적 이질성을 보였다. 이러한 공간적 동질 요인과 이질 요인을 구분함으로써 국가 단위 분석에서는 포착되기 어려운 대도시 내부의 미시적 공간 불평등 구조와 취약성 재생산 메커니즘을 보다 정밀하게 설명할 수 있음을 보여준다.
이 논문은 에너지 빈곤을 다중 스케일, 계절 민감적, 구조–행동 요인의 상호작용 속에서 이해할 필요성을 실증적으로 제시함으로써 이론적 기여를 제공한다. 동시에 전국 수준의 취약성 유형 식별과 대도시 내부의 공간 진단을 결합한 분석 틀을 통해 획일적 소득 지원을 넘어 지역·계절·공간 특성을 반영한 정책 설계의 필요성을 실증적으로 제시한다. 이러한 결과는 최근 시행된 「분산에너지 활성화 특별법」과 같이 지역 맞춤형 에너지 정책이 가능해지는 제도적 변화 속에서 에너지 빈곤 완화를 위한 보다 정교하고 효율적인 정책 설계에 중요한 근거를 제공한다.

Energy poverty is a multidimensional social problem arising from the combined effects of insufficient income, housing conditions, energy prices, climatic exposure, and household behavioural characteristics. Its significance has intensified as climate change and energy transitions accelerate. In countries such as South Korea, where regional disparities in climate and housing conditions are substantial and seasonal temperature variation is pronounced, energy poverty exhibits structural features that cannot be adequately captured or alleviated through single indicators or uniform policy designs. Nevertheless, existing research has largely relied on annual, income-centred measures and national-average analyses, limiting its ability to identify regional heterogeneity, seasonal dynamics, and micro-scale vulnerability structures within cities.
To address these limitations, this dissertation adopts a two-tier analytical strategy that integrates national-scale machine learning analysis with megacity-scale spatial regression. At the national level, household-level monthly data from 2018 to 2022 are used to predict energy poverty and to examine how regional, seasonal, and behavioural factors shape vulnerability mechanisms through machine learning models and SHAP-based interpretation. At the urban scale, Seoul is analysed using administrative-district-level spatial data to investigate how energy poverty vulnerability is spatially concentrated and differentiated within a single megacity.
The national analysis shows that energy poverty cannot be explained by income alone. When income is excluded from the predictive model, primary heating fuel type, employment status, and heating degree days (HDD) emerge as the most influential determinants. Region-based clustering further identifies five distinct regional vulnerability types, demonstrating that energy poverty manifests differently depending on the interaction between housing structure, energy infrastructure, and climatic conditions. Heating-related structural factors consistently exert stronger effects than cooling-related variables, indicating that energy poverty in South Korea is primarily driven by year-round, heating-oriented structural vulnerability. In summer, vulnerability is shaped mainly by socioeconomic constraints. In winter, by contrast, energy poverty intensifies through entrenched structural factors. Some Behavioural factors exhibit moderate level of importance in the predictive model. However, they function primarily as contextual indicators of households’ remaining cognitive or financial capacity, rather than as independent mechanisms capable of offsetting structural deprivation.
The spatial analysis of Seoul reveals that energy poverty vulnerability is not uniformly distributed across the city. Several determinants—including the proportion of single-person households, low-income households, floor area, and cooling centres and warm banks—exhibit spatially homogeneous effects, consistently shaping vulnerability across all districts. In contrast, factors such as the proportion of elderly households and apartment, population density, and park area display significant spatial heterogeneity, indicating that their effects vary by location. By explicitly distinguishing between spatially homogeneous and heterogeneous determinants, the analysis uncovers micro-scale spatial inequalities within the megacity that are obscured in national-level studies. These findings complement the national analysis by illustrating how broad vulnerability structures are locally embedded and reproduced within urban space.
This dissertation contributes theoretically by advancing the understanding of energy poverty as a multi-scalar and seasonally sensitive phenomenon. Methodologically, it demonstrates the value of combining interpretable machine learning with spatial regression to bridge macro-level pattern identification and micro-level spatial diagnosis. From a policy perspective, the findings highlight the need to move beyond uniform income-based support toward regionally and spatially differentiated strategies that reflect local housing conditions, energy systems, and climatic exposure. In the context of recent institutional changes—such as the enforcement of the Special Act on the Promotion of Distributed Energy, which enables regionally differentiated energy pricing—this integrated analytical framework provides an empirical foundation for more precise, efficient, and equitable energy poverty policy design.
