차륜–레일 접촉면에서는 구름접촉피로(RCF, Rolling Contact Fatigue)에 기인한 균열이 상시 발생할 수 있으며, 이로 인한 절손(Fracture)을 예방하기 위해서는 손상 상태를 정량적·체계적으로 진단하는 기술이 필수적이다. 그러나 최근 제정된 「궤도시설 성능평가 세부지침」상 레일 손상 진단 및 등급 산정은 여전히 외관(육안)조사 결과에 기반하고 있어, 점검자의 경험과 주관에 따라 평가 결과가 달라질 수 있는 정성적 한계를 가진다. 이에 본 연구는 레일 구름접촉피로 손상에 대한 과학적·정량적 평가체계를 확립하기 위하여, 현장조사·실내시험을 수행하고 레일표면손상 등급을 체계화하여 통합 이미지분석 기반 모델을 이용한 레일 손상 진단 기법과 이를 탑재한 스마트폰 앱 시스템을 제시하였다.
운행선에서 RCF 손상이 발생한 구간을 대상으로 현장조사를 수행하여 레일 손상 유형을 분류하고, 손상부 레일 시편을 채취하였다. 채취 시편에 대해 전자주사현미경(SEM) 시험을 실시하여 표면결함과 내부 균열 특성(깊이, 길이, 각도 등)의 상관관계를 분석하였으며, 현장 표면이미지와 SEM 내부손상 이미지를 페어링하여 학습용 이미지 데이터베이스를 구축하였다. 손상 유형은 Headcheck, Spalling, Shelling의 3개 클래스로 정의하였고, 동시에 IRS 70712 기준을 준용하여 기존 2유형–4등급 체계를 3유형–6등급(6-Class)으로 세분화함으로써, 손상 유형과 진행 단계(경미–중간–심각)를 동시에 반영하는 정량적 등급체계를 확립하였다. 이러한 6-Class 표준은 학습데이터 라벨 체계에 직접 적용되어, 각 이미지에 대해 손상유형(3유형)과 심각도(1~6등급)를 동시에 부여하는 멀티라벨 구조의 데이터셋으로 구축되었다.
딥러닝 모델 측면에서는 레일표면손상 이미지로부터 손상 위치를 검출하고 유형·등급을 동시에 판별하기 위하여, Faster R-CNN과 EfficientNetV2를 결합한 통합 알고리즘을 설계하였다. EfficientNetV2는 백본(backbone)으로서 고도화된 합성곱 신경망 구조를 통해 Headcheck, Spalling, shelling과 같은 미세한 패턴을 효율적으로 추출하며, Faster R-CNN 모듈은 해당
특징맵을 이용해 손상 후보영역을 제안하고, 각 영역에 대해 손상유형 및 6Class 등급을 동시에 추론한다. 시험 결과, 제안된 Faster R-CNN+EfficientNetV2 통합 모델은 기존 머신러닝 및 단일 딥러닝 모델 대비 우수한 인식 성능을 보였으며, 평균 정확도(정답률)는 약 95% 수준으로 나타나 레일 손상 검출 및 분류에 효과적인 것으로 분석되었다. 또한 전체 처리시간은 18.7초에서 17.3초로 약 7.5% 감소하고, 이미지당 평균 처리시간은 2.35 ms/image에서 2.15 ms/image로 약 8.5% 단축되어, 대량 이미지 처리 및 근실시간(near real-time) 진단 환경에 적합한 처리 효율을 확보하였다.
개발된 통합 딥러닝 모델은 클라우드 기반의 빅데이터 서버와 연동되는 레일 손상 진단 애플리케이션에 탑재되었다. 사용자는 스마트폰으로 레일 표면을 촬영하기만 하면, 앱이 자동으로 손상 위치를 검출하고 손상 유형(Headcheck·Spalling·Shelling)과 6등급 중 해당 등급을 제시하며, 인적오류에 따른 진단 편차가 매우 작고, 제안 기법이 육안 중심 조사 방식의 주관성을 효과적으로 보완하는 것으로 평가되었다. 나아가 진단 결과는 시간·위치 정보와 함께 체계적으로 빅데이터화됨으로써, 향후 궤도 손상이력의 과학적 추적과 RCF 손상 발생·진전 특성 분석, 유지관리 정책 고도화에 활용될 수 있는 기반을 마련하였다.

Cracks caused by Rolling Contact Fatigue (RCF) occur frequently at the wheel-rail interface. To prevent resulting fractures, it is essential to develop technologies that can diagnose damage conditions both quantitatively and systematically. However, current rail damage diagnosis and rating systems, such as those in the recently established Detailed Guidelines for Performance Evaluation of Track Facilities, still rely heavily on visual inspections. This qualitative approach has limitations, as results can vary based on the inspector's experience and subjectivity. This study establishes a scientific and quantitative evaluation system for RCF damage by conducting field surveys and laboratory tests. It proposes a rail damage diagnosis technique using an integrated image analysis-based model and a sm
artphone application system. Field investigations were conducted in sections where RCF damage occurred, and rail specimens were collected to classify damage types. Scanning Electron Microscopy (SEM) was performed on these specimens to analyze the correlation between surface defects and internal crack characteristics (depth, length, angle, etc.). A training database was constructed by pairing field surface images with SEM internal damage images.
Damage types were defined into three classes: Head check, Spalling, and Shelling. By adopting the IRS 70712 standards, the existing 2-type/4-grade system was refined into a 3-type/6-grade (6-Class) system. This established a quantitative rating framework that reflects both the damage type and its progression stage (slight–moderate–severe). This 6-Class standard was directly applied to the training data labeling system, creating a multi-label dataset where each image is assigned both a damage type and a severity grade.
Regarding the deep learning model, an integrated algorithm combining Faster R-CNN and EfficientNetV2 was designed to detect damage locations and simultaneously determine types and grades. EfficientNetV2 serves as the backbone, utilizing an advanced convolutional neural network to efficiently extract fine patterns such as Head checks. The Faster R-CNN module then uses these feature maps to propose candidate damage regions and infer the damage type and 6-Class grade for each.
The test results showed that the integrated Faster R-CNN + EfficientNetV2 model outperformed conventional machine learning and single deep learning models, achieving a mean accuracy of approximately 95%. Furthermore, total processing time was reduced by 7.5% (from 18.7s to 17.3s), and the average processing time per image improved by 8.5% (from 2.35 ms/image to 2.15 ms/image), ensuring efficiency for large-scale image processing and near realtime diagnostics.
The developed model was embedded into a cloud-based rail damage diagnosis application. By simply capturing images of the rail surface, the app automatically detects damage locations and provides the specific type and grade.
This system minimizes human error and effectively complements the subjectivity of visual inspections. Furthermore, by transforming diagnostic results into big data with time and location stamps, this study provides a foundation for scientific tracking of track damage history, analysis of RCF progression, and the advancement of maintenance policies.
