    수중 환경에서 음파는 원거리 정보 전달을 위한 핵심 수단으로 다양한 분야에서 활용된다. 그러나 시공간적으로 불균일한 해양 환경에서 음파 전파를 정확히 예측하는 것은 여전히 난제이다. 전통적인 음향 전파 모델은 상세한 환경 정보를 필요로 한다는 실용적 한계가 있으며, 데이터 기반의 심층 신경망 모델은 방대한 학습 데이터를 요구하고 물리적 타당성을 보장하기 어렵다. 이러한 데이터 기반 모델의 한계를 보완하기 위해 물리 제약을 도입한 Physics-Informed Neural Network(PINN)이 제안되었으나, MLP 기반 구조는 파장이 짧고 공간 변동이 큰 고주파 음향장 학습 시 스펙트럼 편향(spectral bias)으로 인해 수렴과 정확도 측면에서 한계를 보인다.
    본 연구에서는 이를 극복하기 위해, 물리 기반 구조를 갖는 Ray-Basis Neural Network(RBNN)와 PINN의 물리 제약 손실 함수를 결합하여 성능을 개선한 모델인 Ray-PINN을 제안한다. 제안 모델은 평면파 근사를 신경망 구조에 내재화하여 고주파 표현력을 확보하고, 희소 데이터 좌표에서 헬름홀츠 방정식의 잔차를 최소화함으로써 물리 법칙을 강력한 정규화(regularization) 기제로 활용한다.
    실험 결과, Ray-PINN은 희소 데이터 환경(등속 조건)에서의 AOI 내 예측(Prediction) 성능에서 기존 RBNN 대비 약 54\%의 오차 감소를 달성하며 탁월한 데이터 효율성을 입증하였다. 또한, 심도에 따라 음속이 변화하여 굴절이 발생하는 현실적인 해양 환경에서의 추가 실험을 통해, 제안 모델이 RBNN 대비 약 22\%의 성능 향상을 유지하며 환경 변화에 강건하게 작동함을 확인하였다. 확장된 영역 예측 실험에서는 원거리 평면파 가정이 유효한 영역에서 물리 제약이 오차를 효과적으로 보정하는 반면, 상대적으로 파면의 곡률이 큰 음원 방향으로 확장된 영역에서는 구조적 불일치로 인해 오차가 증폭될 수 있음을 규명하였다. 본 연구는 RBNN 구조와 물리 제약의 결합이 데이터 희소성을 극복하는 효과적인 해법임을 제시하는 동시에, 영역의 물리적 특성 및 환경 복잡도에 따른 모델의 거동 특성을 밝혀냄으로써 향후 과학적 기계 학습(SciML) 모델 설계에 중요한 방향성을 제공한다.

    Sound waves in underwater environments serve as a key means of long-range information transmission and are used across a wide range of applications. However, accurately predicting acoustic propagation in ocean environments that are spatiotemporally heterogeneous remains a challenging task. Traditional acoustic propagation models have a practical limitation in that they require detailed environmental information, while data-driven deep neural network models demand large-scale training data and struggle to guarantee physical validity. To address these limitations, Physics-Informed Neural Networks (PINNs), which incorporate physical constraints, have been proposed; however, MLPbased architectures suffer from spectral bias when learning high-frequency acoustic fields with short wavelengths and strong spatial variations, leading to limitations in both convergence and accuracy.
    In this study, to overcome these issues, we propose Ray-PINN, a model that improves performance by combining a Ray-Basis Neural Network (RBNN) with a physicsconstrained loss function from PINNs. The proposed model embeds a far-field plane-wave approximation into the neural network architecture to enhance representational capacity in the high-frequency regime, and leverages physical laws as a strong regularization mechanism by minimizing the residual of the Helmholtz equation at sparsely sampled training coordinates.
    Experimental results show that, under sparse-data conditions with a constant soundspeed environment, Ray-PINN achieves an error reduction of approximately 54% compared to a baseline RBNN for prediction performance within the area of interest (AOI), demonstrating superior data efficiency. In additional experiments under realistic ocean conditions where sound speed varies with depth and refraction occurs, the proposed model maintained an improvement of approximately 22% over RBNN, confirming robustness to environmental changes. In extended-domain prediction experiments, physical constraints effectively corrected errors in regions where the far-field plane-wave assumption remains valid; in contrast, in regions extended toward the source direction—where wavefront curvature is relatively large—errors could be amplified due to structural mismatch. This study demonstrates that combining the RBNN structure with physical constraints is an effective solution for overcoming data sparsity, and further provides important guidance for future Scientific Machine Learning (SciML) model design by elucidating model behavior as a
    function of domain physical characteristics and environmental complexity.
