Object detection has been widely adopted across industries, including manufacturing, autonomous driving, and medical imaging. However, a significant gap persists between the de facto standard metric, mAP (mean Average Precision), and the practical demands of real-world deployment. While mAP effectively summarizes general performance independent of any single operating threshold, it fails to address critical practitioners’ dilemmas: (i) selecting a single, optimal operating threshold; (ii) accounting for domain-specific, asymmetric error costs (e.g., false positives vs. false negatives); and (iii) ensuring robustness against minor distribution shifts that can cause performance to collapse. To address this gap, this paper proposes a Cost–Stability Framework for object detection deployment, which integrates local robustness optimization (selection) with generalization stability assurance (audit) into a unified procedure. The framework's core involves two stages. First, the selection stage identifies the optimal model–threshold pair by optimizing DSR-LRP, a novel objective function. DSR-LRP builds on csLRP—a re-parameterization of the LRP metric reflecting domain-specific error costs and localization importance—by also minimizing performance variance within a local robustness band (w). This threshold optimization is performed and fixed strictly on the validation set. Second, the audit stage ensures deployment reliability. It verifies that the selected pair's performance degradation—when generalized to the unseen test dataset—remains within a predefined stability tolerance, a check enforced using a statistical bootstrap upper bound. We validated the framework's efficacy across four heterogeneous domains (blood cells, wildfire smoke, potholes, semiconductor sensors), using three distinct architectures and two checkpointing strategies. The results demonstrate that the framework functions as a critical safety gate: it correctly halts deployment when no candidate meets the strict stability requirements (Scenario 2) and successfully filters candidates with poor generalization stability (Scenarios 3 & 4). Critically, the model–threshold pair ultimately selected by the framework also exhibited superior operational performance and robustness under stress-test conditions. This study's primary contribution is the transformation of model deployment—a process often reliant on subjective practitioner judgment—into a data-driven, transparent, repeatable, and auditable engineering workflow.
