This study proposes a Physics-Conditioned Graph Neural Network (PC-GNN) model that preserves structural mechanical topology to precisely and efficiently predict the non-linear fracture behavior essential for the safety assessment of Reinforced Concrete (RC) structures. This presents a novel approach to simultaneously overcome the prohibitive computational costs of existing Non-linear Finite Element Analysis (NLFEA) and the loss of physical connectivity inherent in general image-based deep learning models. The proposed methodology establishes a data pipeline that directly transforms unstructured node data into inputs for graph neural networks, based on the mathematical homology between finite element mesh data and graph structures. The model architecture adopts a Hybrid Encoder that integrates macroscopic design variables and microscopic stress states. In particular, to precisely capture local stress concentrations and crack propagation paths, a dynamic attention mechanism (GATv2) and residual connection techniques are applied to maximize the physics-informed learning capability. Through 5-Fold cross-validation using a total of 24 RC beam simulation datasets (approximately 860,000 nodes), the proposed model achieved a coefficient of determination (𝑅2) of 0.888 and a Root Mean Square Error (𝑅𝑀𝑆𝐸) of 0.054 mm, demonstrating superior prediction accuracy compared to existing baseline models such as XGBoost and MLP. Furthermore, by securing scores exceeding 0.80 in both mean Intersection over Union (mIoU) and Structural Similarity Index Measure (SSIM)—indicators of spatial shape accuracy—the model proved its ability to reproduce crack initiation locations and shapes in a physically plausible manner, going beyond simple numerical regression. Moreover, to ensure the practical reliability of the deep learning model, this study constructed a probabilistic safety assessment framework based on Monte Carlo Dropout (MC Dropout). This enables the quantitative calculation of the 95% confidence interval for prediction results and the Risk Probability of exceeding allowable crack widths, thereby supporting engineering decision-making. In terms of computational efficiency, the proposed model achieved a computational speed-up of approximately 213,575 times compared to traditional NLFEA. Consequently, this technology is expected to serve as a fundamental solution for establishing Digital Twin-based Real-time Structural Health Monitoring (SHM) systems.
