다단 딥 드로잉 공정 설계는 재료, 기하, 접촉 상호작용이 강하게 결합되어 발생하는 비선형 거동이 경로 의존적인 성형 공정에 의해 더욱 강화되기 때문에 본질적으로 어렵다. 더 나아가, 성형 단계가 진행될수록 이러한 비선형성은 증폭 및 누적되며, 박판에서 발생하는 중간 단계 결함 모드는 신뢰성 있는 공정 설계를 근본적으로 복잡하게 만든다.
본 연구에서는 이러한 문제를 체계적으로 해결하기 위해 신경망 모델과 흐름도 기반 의사결정 논리를 통합한 새로운 성형 평가 함수를 제안한다. 이 평가 함수를 기반으로 다단 딥 드로잉 공정 설계 최적화를 위한 프레임워크를 개발하였다.
첫 번째 단계에서는 유한요소 시뮬레이션을 통해 성형 공정 데이터를 구축하고, 성형성, 제품 높이, 두께를 예측하기 위한 세 종류의 신경망 모델을 개발한다. 두 번째 단계에서는 이들 모델을 흐름도 기반 의사결정 로직과 결합하여, 단계별 결함 발생, 형상 정확도, 그리고 두께 품질을 동시에 고려하는 성형 평가 함수를 구성함으로써, 다단 딥 드로잉 공정 설계 문제를 순차적 의사결정 및 평가 문제로 근본적으로 재정의하였다. 이 함수는 단계별 순차 평가를 통해 중간 단계에서의 결함 모드를 명시적으로 반영하며, 기존의 신경망 모델만으로는 제시할 수 없었던 성형 단계 수를 함수의 출력으로 제공한다.
세 번째 단계에서는 평가 함수를 다목적 최적화 알고리즘과 결합하여, End-to-End 다단 딥 드로잉 공정 추천 시스템을 개발한다. 제안된 추천 시스템은 목표 형상을 주요 입력으로 사용하여 약 1분 이내에 준최적 공정 설계를 도출한다.
추천 시스템은 먼저 원통형 컵의 다단 딥 드로잉 공정을 대상으로 개발되었으며, 이후 흐름도 기반 의사결정 구조의 유연성을 활용하여 사각 컵으로 확장되었다. 두 형상에 대한 다단 딥 드로잉 공정 최적화 사례 연구를 통해 시스템의 실질적인 유효성을 검증하였다.
제안된 추천 시스템은 일회성 최적화 도구가 아니라, 다양한 치수를 갖는 제품의 공정 설계 최적화에 반복적으로 적용할 수 있는 재사용 가능한 프레임워크이다. 또한 흐름도 기반 의사결정 논리의 높은 유연성으로 인해, 다른 금속 성형 및 재료 공정 설계 문제로의 확장 가능성을 지니며, 제조 공정 설계 자동화를 위한 기반을 제공한다.

Multistage deep drawing process design is inherently challenging because nonlinear behavior arising from strongly coupled material, geometric, and contact interactions is further amplified by path-dependent forming stages. As forming stages progress, these nonlinearities are accumulated and further amplified, and intermediate-stage defect phenomena in thin sheets fundamentally complicate reliable process design.
In this study, a novel forming evaluation function that integrates neural network models with flowchart-based decision-making logic is proposed to systematically address these challenges. Based on this function, a multistage deep drawing process design optimization framework is developed.
In the first step, forming process data are constructed using finite element simulations, and three types of neural network models are developed to predict formability, product height, and thickness. In the second step, these models are combined with flowchart-based decision-making logic to construct a forming evaluation function that fundamentally reformulates multistage deep drawing process design as a sequential decision and evaluation problem, simultaneously accounting for stage-wise defect occurrence, shape accuracy, and thickness quality. This function explicitly captures intermediate-stage defect modes through sequential stage evaluation and provides the number of forming stages as a function output, which cannot be achieved using conventional neural network models alone.
In the third step, the evaluation function is integrated with a multi-objective optimization algorithm to construct an end-to-end multistage deep drawing recommendation system. The proposed system takes the target geometry as the primary input and efficiently derives near-optimal process designs within approximately one minute.
The recommendation system is initially developed for multistage deep drawing of cylindrical cups and then extended to rectangular cups by leveraging the flexibility of the flowchart-based decision logic. Its practical effectiveness is validated through optimization case studies of multistage deep drawing processes for both geometries.
The proposed recommendation system is not a one-time optimization tool but a reusable framework that can be repeatedly applied to process design optimization for products with diverse dimensions. Furthermore, owing to the high flexibility of its flowchart-based decision-making logic, the proposed framework has the potential to be extended to other metal forming and material processing design problems, providing a foundation for the automation of manufacturing process design.
