자율주행차의 안전성 검증을 위해 시나리오 기반 시험의 중요성이 증가하고 있으나, 실제 상용 자율주행차의 감속 판단 로직은 블랙박스 형태로 구현되어 있어 외부에서 그 작동 기준을 파악하는 데 한계가 있다. 특히 컷인(cut-in) 상황에서의 감속 판단은 시간에 따라 누적되는 동역학적 변화에 기반하여 이루어지므로, 기존 실차시험 기반 시스템 작동시점 분석만으로는 감속 판단 이전의 의사결정 과정을 충분히 설명하기 어렵다.
본 연구에서는 실차시험 데이터를 기반으로 컷인 상황에서 자율주행차의 감속 판단 특성을 머신러닝으로 분석하고 감속 판단 이전 구간의 시계열 동역학 변화를 학습하여 자율주행차의 감속 의사결정 구조를 분석하는 방법을 제안한다. 이를 위해 시계열 기반 모델인 LSTM(Long Short-Term Memory)을 활용하여 감속 판단을 연속적인 위험 누적 과정으로 모델링하고, 각 프레임에서의 감속 확률을 예측하였다. 이후 LSTM의 출력 확률을 Random Forest로 근사하여 프레임 단위 해석을 가능하게 하고 Decision Tree를 통해 감속 판단을 해석 가능한 규칙 형태로 단순화하였다.
제안한 방법론을 KIA K8과 Tesla Model 3의 컷인 실차시험 데이터에 적용한 결과, LSTM 모델은 두 차량 모두에서 높은 AUC 및 PR-AUC를 기록하며 감속 판단과 관련된 시계열 패턴을 안정적으로 학습하였다. Random Forest 모델은 LSTM의 감속 확률 출력을 낮은 RMSE 수준으로 근사하였고 Decision Tree는 감속 판단을 높은 재현율을 유지한 상태에서 해석 가능한 작동 범위로 요약하였다. 차량별 분석 결과, KIA K8은 횡방향 충돌 위험 지표와 종방향 TTC 기반의 감속 판단 특성을 보였다. 반면 Tesla Model 3는 횡방향 침입 정도 및 변화량를 고려한 감속 전략을 나타냈다.
본 연구는 실차시험 데이터를 기반으로 자율주행차의 블랙박스 형태의 감속 판단 로직을 외부에서 해석 가능하게 복원하였다는 점에서 의의가 있다. 이를 통해 향후 자율주행차 평가용 시나리오 설계, ADAS 성능 비교, 그리고 시나리오 기반 검증 체계 고도화에 활용될 수 있을 것으로 기대된다.

The importance of scenario-based testing for validating the safety of autonomous vehicles has been increasing; however, the deceleration decision logic of commercial autonomous vehicles is typically implemented as a black box, making it difficult to identify its operational criteria from an external perspective. In particular, deceleration decisions in cut-in scenarios are based on dynamically accumulated changes over time, and thus conventional analyses that rely solely on identifying system activation points from real-world vehicle tests are insufficient to fully explain the decision-making process preceding deceleration.
In this study, we propose a methodology to analyze the deceleration decision characteristics of autonomous vehicles in cut-in scenarios using machine learning based on real-world driving test data. The proposed approach learns time-series dynamic changes occurring prior to deceleration and investigates the underlying decision-making structure of autonomous vehicles. To this end, a time-series model based on Long Short-Term Memory (LSTM) networks is employed to model deceleration decisions as a continuous risk accumulation process and to predict the deceleration probability at each time frame. Subsequently, the output probabilities of the LSTM are approximated using a Random Forest model to enable frame-level interpretation, and the deceleration decision process is further simplified into interpretable rule-based representations using a Decision Tree.
The proposed methodology was applied to real-world cut-in test data collected from a KIA K8 and a Tesla Model 3. The LSTM model achieved high AUC and PR-AUC scores for both vehicles, demonstrating its capability to stably learn time-series patterns associated with deceleration decisions. The Random Forest model approximated the LSTM output probabilities with a low RMSE, while the Decision Tree summarized the deceleration decision logic into interpretable operational rules while maintaining a high recall. Vehicle-specific analysis revealed that the KIA K8 primarily relied on lateral collision risk indicators and longitudinal time-to-collision (TTC) for deceleration decisions. In contrast, the Tesla Model 3 exhibited a deceleration strategy that emphasized the degree and rate of lateral intrusion.
This study is significant in that it reconstructs and interprets the black-box deceleration decision logic of commercial autonomous vehicles using real-world test data. The proposed approach is expected to contribute to future scenario design for autonomous vehicle evaluation, comparative analysis of ADAS performance, and the advancement of scenario-based verification frameworks.
