Addressing food security challenges requires not only understanding the current status but also identifying the underlying causes of food insecurity. Food security is a complex issue determined by multidimensional factors. The Integrated Food Security Phase Classification (IPC) effectively classifies food insecurity levels at the regional level. However, it has limitations such as spatial and temporal gaps in evaluation and insufficient consideration of structural drivers. In recent years, machine learning techniques and explainable AI (XAI) have been increasingly applied to complement these limitations by enhancing the prediction and interpretation of food insecurity. This study aims to develop a model framework for assessing and predicting food insecurity by integrating diverse open-access data, including climate, environmental, agricultural, and socio-economic factors, across 256 administrative units in 18 West African countries. An analytical framework was developed by integrating an XGBoost-based machine learning assessment model with SHAP value–based contribution analysis. This framework enables both the prediction of food insecurity and the identification of key factors underlying regional vulnerability. The model achieved an F2 score of 0.7, demonstrating effective predictive performance for assessing food security in West Africa. The resulting predictions also helped fill spatial gaps in IPC-based assessments by extending coverage to regions with missing information. Furthermore, regional clustering based on structural characteristics was conducted, and SHAP values were used to identify the main drivers associated with each food insecurity phase. Four cluster types with distinct socio-structural, agricultural, and climatic characteristics were identified, and each cluster exhibited unique factor contributions across food insecurity phases. These findings demonstrate that the determinants of food insecurity vary regionally and highlight the need for tailored, context-specific policy interventions. Overall, this study presents a framework capable of both quantitatively assessing food insecurity and explaining region-specific vulnerability factors across West Africa. The framework provides valuable evidence to support policy design and operational decision-making that reflects the diverse food security vulnerabilities of countries and regions in the area.
