AI를 이용한 A2/O 공법 적정 운전인자 도출
최근 도시의 확장과 산업의 다양화 및 고도화로 인해 하수와 폐수의 발생량과 배출되는 오염물질의 농도가 증가하고 있으며, 이러한 이유로 하천과 호소에서 녹조류 발생 등 수생태계 오염이 심화하고 있다. 이와 같은 환경 관련 문제로 인해 하수처리시설의 방류수에 대한 총유기탄소(TOC), 총질소(T-N) 및 총인(T-P) 등의 배출허용기준이 강화되고 있다.
이에 따라 하수와 폐수 처리시설에는 다양한 고도처리 기술이 적용되고 있으며, 그중에서도 A2/O (Anaerobic-Anoxic-Oxic) 공법은 생물학적 처리방법으로 질소 및 인 제거에 효과적이면서도 경제적인 고도처리 기술로 널리 활용되고 있다. A2/O 공법은 공정의 특성상, 무산소조 및 호기조 운전 인자의 최적화가 처리 효율 향상에 핵심적인 요소로 작용한다. 기존에는 운전자의 경험에 의존한 비정량적 조절이 많았으며, 이로 인해 처리 비용이 증가하고 수질 불안정이 발생할 수 있었다. 따라서 하수처리시설의 안정적인 운영을 위해서는 운전 데이터를 기반으로 최적 운전조건을 도출하고 이를 관리할 수 있는 체계 마련이 요구된다.
본 연구에서는 공공하수처리시설에서 사계절을 포함한 12개월간의 운영 데이터를 바탕으로, A2/O 공법의 주요 운전 인자인 무산소조 산화환원전위(ORP), 호기조 용존산소(DO), 내부반송률(IR) 및 혼합액 부유고형물(MLSS) 농도가 방류수의 총질소(T-N), 총유기탄소(TOC), 총인(T-P) 등에 미치는 영향을 정량적으로 분석하였다. 또한 인공지능(AI) 기반 기법을 도입하여 다변수 간 상관관계와 비선형 거동을 모형화하고, 공정의 최적 운전조건을 도출하였다. 데이터 전처리 후 시계열 분석, 상관 분석, 회귀 모형과 함께 Visual Studio Code (VS Code), XGBoost와 같은 머신 러닝 (Machine Learning) 알고리즘을 적용함으로써, 운전 인자와 방류 수질 간 관계를 규명하였다.
분석 결과, ORP가–150~–100mV, DO가 3.0 ~ 4.0mg/L, IR이 250~300% 범위일 때 TOC 및 T-N 제거 효율이 가장 우수한 것으로 나타났다. 이 조건은 탈질과 질산화 반응의 균형이 이루어져, BOD, TOC 등의 유기물과 질소를 효과적으로 제거할 수 있는 최적 영역으로 확인되었다. AI 기반 예측 모델의 결정계수(R²)는 TOC R² = 0.84, T-N과 T-P는 각각 R² = 0.73, R² = 0.69 이상으로, 우수한 예측 정확도를 나타냈다. 도출된 최적 운전조건을 실제 현장에 적용할 경우, 총질소 제거율은 약 15%, 총유기탄소 제거율은 약 10% 향상될 수 있는 것으로 분석되었다.
본 연구에서 제시한 운전 인자의 최적 범위는 하수처리 공정의 안정성과 처리 효율을 동시에 달성할 수 있는 실무 적용 가능한 과학적 지침으로 활용될 수 있을 것으로 판단된다.

With the expansion of urban areas and the intensification of industrial activities, both the volume and pollutant concentrations of wastewater have increased significantly. As a result, regulatory standards for effluent quality—particularly for total organic carbon (TOC), total nitrogen (T-N), and total phosphorus (T-P)—have become increasingly stringent in order to protect aquatic ecosystems and mitigate eutrophication.
The Anaerobic-Anoxic-Oxic (A2/O) process is widely adopted as a cost-effective and efficient biological treatment method for the removal of nitrogen and phosphorus. However, its performance is highly dependent on the precise control of operational parameters in the anoxic and aerobic zones. Conventional operation based on operator experience often results in inefficiencies and unstable effluent quality. Therefore, a scientific and data-driven approach is essential for identifying optimal operating conditions.
This study analyzed one year of full-scale operational data from a municipal wastewater treatment facility to assess the effects of key parameters—oxidation-reduction potential (ORP), dissolved oxygen (DO), internal recirculation ratio (IR), and mixed liquor suspended solids (MLSS)—on effluent concentrations of T-N, TOC, and T-P. Artificial intelligence (AI) techniques, including XGBoost regression implemented in Visual Studio Code, were used to model nonlinear relationships and determine optimal parameter combinations.
The results indicated that optimal nitrogen and organic matter removal were achieved under the following conditions: ORP of –150 to –100 mV, DO of 2.0–4.0 mg/L, IR of 250–300%, and MLSS of 7,000–9,000 mg/L. The AI-based model demonstrated high predictive accuracy (TOC R²≈0.84, T-N ≈0.73, T-P ≈0.69) and application of the derived optimal ranges led to an estimated 15% improvement in T-N removal and a 10% improvement in TOC removal. These findings offer a scientific basis for the stable and efficient operation of A2/O systems and support the development of real-time, automated control strategies based on continuous ORP and DO monitoring.
