    Construction sites with deep soft clay deposits frequently experience significant consolidation settlements. This gradual compression process can continue for years and may pose various risks to the structure, including tilting, and cracking. Therefore, accurate settlement prediction is essential for ensuring safe and reliable construction on soft soil deposits.
    In general, settlement prediction methods can be categorized into design phase and construction phase approaches. Design phase predictions are typically based on analytical solutions and numerical simulations that utilize geotechnical parameters and construction details to estimate settlement. However, achieving accurate predictions in the design phase is often difficult due to the inherent variability and uncertainty of geotechnical parameters.
    During the construction phase, observational methods, such as the hyperbolic method, are employed to improve predictive accuracy by incorporating actual settlement measurements. Although these methods can yield more reliable results, they typically require extensive measurement data.
    Recently, deep learning (DL) models have emerged as promising tools for the prediction of consolidation settlement. However, these approaches have several limitations. Most existing research focuses solely on the construction phase, relying on historical measurements at specific locations without incorporating geotechnical parameters. Consequently, they are unsuitable for design‒phase predictions, where field measurements are unavailable.
    In addition, many studies use limited datasets and lack comprehensive comparisons among different DL models. Most models also predict settlement only after the final fill, without addressing settlements under staged loading. A critical drawback is that purely data‒driven models may generate physically inconsistent predictions, such as sudden changes in settlement behavior.
    Therefore, this dissertation aims to bridge these gaps by constructing, validating, and comparing advanced DL‒based settlement prediction models for soft ground construction projects. The research mainly utilized data from Busan Newport, South Korea, and is structured around both the design and construction phases.
    For the design phase, two hybrid models sequence long short term memory (LSTM)–Transformer and the parallel LSTM–Transformer were introduced. These models generate time–settlement predictions using geotechnical and construction information. The models were trained and tested on 98 comprehensive datasets constructed through 3D interpolation of geotechnical properties and construction information. Comparative analyses demonstrated that both models consistently outperformed traditional methods such as the Hansbo method even when faced with novel geotechnical and construction information.
    For the construction phase, four distinct data‒driven models including the artificial neural network (ANN), gated recurrent unit (GRU), LSTM, and Transformer was developed. Settlement measurements collected after the final fill were utilized and the models were evaluated using 789 training and testing scenarios, classified by: (1) the average degree of consolidation; (2) the proportion of data; and (3) the number of data points.
    The results demonstrated that the DL models, particularly LSTM and GRU, outperformed observational methods, providing more accurate predictions. For instance, the DL models achieved an average mean absolute percentage error (MAPE) of less than 7% at a degree of consolidation of 40%, while observational methods required data beyond 60% to reach similar accuracy.
    Additionally, a novel PINN‒based framework was introduced to overcome the limitations of data–driven approaches and predict settlements during staged loading. By embedding fundamental consolidation theories, the PINN model incorporates essential physical principles into the prediction process and also leverages measured settlement data for training. As a result, the PINN framework achieved significantly lower RMSE and accurate final settlement predictions compared to data‒driven models and theoretical predictions.

    따라서, 대심도 연약지반에 항만, 공항 등의 구조물이 건설되는 경우, 장기적인 압밀침하로 인해 구조물의 기울어짐과 균열과 같은 심각한 지반공학적 문제가 유발될 수 있다. 이와 같은 지반공학적 문제를 예방하기 위해서는, 잔류침하량을 최소화하고 구조물의 안정성을 높이는 방법 외에도 정확한 침하예측을 통한 관리가 중요하다.

    최근, 딥러닝 기반 모델들이 기존예측 기법들의 한계를 극복하기 위한 대안으로 주목 받고 있다. 하지만, 딥러닝 기반 연구들은 다음과 같은 한계를 가지고 있다. 대부분의 연구가 시공단계에 국한되어 있으며, 특정 위치에서 계측된 과거 침하 계측 데이터에 의존하고, 지반정보를 반영하지 않으므로 설계단계에서는 활용이 불가능하다.
    또한, 소수의 계측 지점만을 사용하거나 다양한 딥러닝 모델 간 비교가 이루어지지 않은 경우가 많으며, 학습 데이터의 크기에 따른 성능 변화도 충분히 분석되지 않았다. 더불어, 대부분의 모델이 최종 성토 이후의 침하만 학습 및 예측하고 있어 단계 성토조건을 고려하지 못하고 있으며, 순수 데이터 기반으로 침하를 예측하므로 비현실적인 침하예측 결과를 생성할 가능성이 있다.
    그러므로, 본 연구에서는 이러한 한계를 극복하고자 각 단계별로 고도화된 딥러닝 기반 침하예측 기법을 개발 및 검증, 그리고 비교 분석하였다. 본 연구는 부산항 신항에서 수집된 데이터를 활용하였으며, 설계단계와 시공단계 침하예측을 위한 기법들을 제시하였다.
    우선, 설계단계 침하예측을 위해 두 가지 하이브리드 모델을 제안하였다. 해당 모델들은 지반정보와 시공정보를 입력으로 하여 시간‒침하 곡선을 생성하도록 설계되었다. 총 98개의 데이터셋을 활용하여 모델 학습 및 검증을 수행하였으며, 본 데이터셋은 공간 보간 된 3차원 지반정보와 시공정보를 포함하였다. 침하예측 결과를 비교분석한 결과, 두 모델 모두 Hansbo 이론 등 기존 기법 대비 우수한 성능을 보였으며, 새로운 지반조건 및 시공조건에서도 높은 예측 성능을 유지하였다.
    시공 단계에서는 ANN, GRU, LSTM, 그리고 Transformer를 포함한 총 네 개의 딥러닝 기반 모델들을 구축하였다. 본 모델들은 최종 성토 이후 수집된 침하를 바탕으로 학습이 진행되었으며, 총 789개의 데이터셋을 통해 모델의 정확도가 평가되었다. 데이터셋은 (1) 평균 압밀도, (2) 학습에 사용된 데이터 비율, 그리고 (3) 학습에 사용된 계측 일 수를 기준으로 분류되었다.
    예측 결과, LSTM과 GRU 모델이 계측기반 침하예측 기법(쌍곡선법, 아사오카법)들 보다 높은 정확도를 나타냈으며, 평균 압밀도 40%까지의 데이터를 학습시킨 경우 RMSE가 10 cm 이하로 나타났다. 반면, 계측기반 침하예측 기법들은 유사한 수준의 정확도를 얻기 위해 최소 평균 압밀도 60% 이상의 데이터가 필요했다.
    또한, 본 연구에서는 순수 데이터 기반 딥러닝 기법들의 한계를 보완하고, 단계 성토 과정에서 발생하는 침하를 예측하기 위해서 물리지식 인공신경망 (PINN) 기반 프레임워크를 제안하였다. 모델 개발 및 학습 과정에서 압밀이론을 내재화 하여 물리적 일관성을 확보하였으며, 계측된 침하 데이터를 학습에 활용함으로써 정확하고 물리적으로 부합하는 침하예측 결과를 생성할 수 있었다. 결과적으로, PINN 모델은 LSTM 모델과 침하이론기반 예측 기법 대비 낮은 평균제곱근오차와 높은 최종침하량 예측 정확도를 나타내었다.
