    지속 가능하고 고성능 에너지 저장 시스템에 대한 수요가 급격히 증가함에 따라, 차세대 이차전지용 신소재 개발을 위한 연구가 활발히 진행되고 있다. 그러나 배터리 구동에 필수적인 화학적, 구조적, 계면 특성들의 복잡한 상호작용으로 인해, 고성능 소재의 발굴은 여전히 큰 도전 과제로 남아 있다. 전통적인 실험 기반의 시행착오적 접근과 제일원리 계산 기반의 시뮬레이션은 소재 특성에 대한 심층적인 이해를 가능케 했지만, 높은 시간적·계산 자원 소모와 낮은 확장성이라는 한계를 지닌다. 이러한 배경에서 최근 주목받고 있는 기계학습 기반 데이터 구동 접근법은 방대한 조성과 구조 공간 내에서 물성 예측 및 패턴 분석을 신속하게 수행함으로써 소재 개발의 속도를 획기적으로 향상시킬 수 있는 대안으로 부상하고 있다.
    본 학위논문은 유기 및 무기계 이차전지 소재의 핵심 물성을 예측하고 분석하기 위해 기계학습 기법을 적용한 두 가지 독립적 연구를 다룬다. 첫 번째 연구에서는 전이금속 기반 전극의 대안으로 주목받는 유기 레독스 활성 물질을 대상으로, 배터리 내에서 발생할 수 있는 비의도적 반응성을 정량적으로 예측하기 위한 ImRRNet(Intermolecular Reaction Rate Network) 모델을 제안하였다. 본 모델은 멀티헤드 어텐션 메커니즘을 활용하여 유기 분자 쌍 간의 반응속도 상수를 예측함과 동시에, 반응성을 유발하는 주요 분자 부분구조를 식별할 수 있도록 설계되었다. 17만 쌍 이상의 반응 데이터로 구성된 Mayr의 친핵성-친전자성 데이터베이스를 기반으로 학습된 ImRRNet은 기존 RNN 기반 모델 대비 우수한 예측 정확도를 보이며, 화학적 직관에 부합하는 해석 가능한 시각화를 제공함으로써 유기 배터리 소재의 설계 및 선별에 효과적으로 기여할 수 있다.
    두 번째 연구는 전고체 배터리용 고체 전해질로 주목받고 있는 삼방정계 할라이드계 고체 전해질의 다결정 구조 내에서 리튬 이온 수송 거동을 규명하고자 한다. 해당 전해질은 높은 벌크 이온 전도도와 전기화학적 안정성을 보이나, 실제 응용 환경에서의 다결정화로 인해 생성되는 결정립계(grain boundary)는 이온 수송을 저해하는 주요 원인으로 작용한다고 받아들여져 왔다. 이를 정량적으로 분석하기 위해 기계학습 포텐셜을 활용하여, 수만 개 원자로 구성된 대규모 다결정 모델에 대한 분자동역학 시뮬레이션을 수행하였다. 분석 결과, 결정립계는 이온 전도도 저하를 유발하기보다, bulk crystalline과의 상호작용을 통해 전반적인 이온 전도도를 향상시키는 것으로 관찰되었다. 결정립계에 의한 새로운 이온 전도 현상을 제시하였으며, 이는 고체 전해질의 미세구조 설계가 이온 수송 성능 향상에 있어 핵심적임을 시사한다.

    The accelerating demand for high-performance and sustainable energy storage systems has driven intensive efforts toward the development of next-generation secondary batteries. However, the discovery of advanced battery materials remains a significant challenge due to the complex interplay of chemical, structural, and interfacial properties involved in battery operation. Conventional trial-and-error approaches, as well as first-principles simulations, have been instrumental in understanding material behavior but often suffer from high computational cost and limited scalability. In this context, data-driven techniques, particularly machine learning (ML), have emerged as promising tools to accelerate material discovery by enabling rapid property prediction and pattern recognition across large compositional and structural spaces.
    This paper presents two studies that apply machine-learned techniques to predict and analyze critical properties of battery materials in organic and inorganic systems. The first study focuses on organic redox-active materials, which offer a sustainable alternative to transition-metal-based compounds but suffer from unpredictable side reactions that hinder their practical use. To address this, a novel ML model named the Intermolecular Reaction Rate Network (ImRRNet) is developed. ImRRNet employs a multi-head attention mechanism to predict reaction rate constants between pairs of organic molecules, while simultaneously identifying the molecular substructures most responsible for reactivity. Trained on a dataset of over 170,000 reaction combinations derived from Mayr’s nucleophilicity–electrophilicity database, ImRRNet achieves superior accuracy compared to conventional RNN-based models and offers interpretability through attention visualizations, providing valuable insights for the chemical design of organic battery components.
    The second study investigates lithium-ion transport in polycrystalline trigonal halide solid electrolytes, a promising class of materials for all-solid-state batteries. Despite their high bulk ionic conductivity and electrochemical stability, the performance of these materials is often considered to be limited by the presence of grain boundaries in practical polycrystalline forms. To quantify and carefully investigate grain boundary effects on diffusional properties of solid electrolyte, a momentum tensor potential (MTP) is trained on DFT-calculated data and applied to large-scale molecular dynamics simulations of model polycrystals. The analysis revealed that, rather than suppressing ion transport, grain boundaries enhanced the overall ionic conductivity through their interaction with the bulk crystalline regions. This finding highlights the critical importance of microstructural design in solid-state electrolyte development.
    Together, these studies demonstrate how data-driven methods can bridge microscopic material behavior and macroscopic battery performance, offering an efficient, interpretable, and scalable framework for accelerating the discovery of functional energy materials. The methodologies developed herein are expected to be applicable across a wide range of material systems and contribute broadly to the advancement of machine learning–assisted materials science.
