본 논문은 고도로 제한된 경계 조건 하에서 발생하는 입자 시스템의 물리적 거동을 정확하고 안정적으로 예측하기 위한 새로운 그래프 신경망 기반 시뮬레이션 프레임워크인 Multi-surface Attention Boundary Graph Neural Network(MABGNN)를 제안한다. 최근 산업 현장과 학술 분야에서 입자 흐름에 대한 수치 시뮬레이션의 수요가 증가함에 따라, 이러한 시스템을 정확하게 예측할 수 있는 효율적인 모델의 필요성이 커지고 있다. 특히, 드럼 회전기나 축 방향으로 제한된 얇은 채널 등과 같이 경계면의 구조가 복잡하고 입자의 움직임이 경계에 의해 강하게 제약받는 시스템에서는 기존의 데이터 기반 시뮬레이션 모델이 물리적으로 일관된 예측을 수행하기 어려운 문제가 지속적으로 제기되어 왔다.
기존의 대표적인 그래프 신경망 기반 시뮬레이터인 Boundary Graph Neural Network(BGNN)는 입자와 가장 가까운 경계 메시 노드 사이에 단일한 상호작용만을 허용하는 구조를 갖고 있다. 이러한 접근 방식은 단순하고 계산적으로 효율적이지만, 실세계 입자 시스템에서 자주 발생하는 복수의 경계면과의 동시 접촉을 제대로 모델링하지 못하며, 이로 인해 물리적으로 불안정한 예측이나 경계면 이탈, 시뮬레이션 붕괴와 같은 문제가 발생한다. 특히, 회전 드럼과 같이 경계면이 계속 회전하며 입자의 상대적 위치가 시간에 따라 빠르게 변화하는 환경에서는 더욱 심각한 구조적 한계를 드러낸다.
이러한 문제를 해결하기 위해 본 연구에서는 다중 경계면 상호작용 구조를 도입함으로써, 각 입자 노드가 복수의 의미 기반 경계면과 동시에 그래프 상의 연결을 형성할 수 있도록 하였다. 이를 통해 기존의 단일 경계 연결 방식이 가지는 표현력의 한계를 극복하고, 더욱 현실적인 입자-경계 상호작용을 모델링할 수 있게 되었다. 더 나아가, 단순히 연결 수를 늘리는 방식이 아닌, 각 경계와의 상호작용에 대한 상대적 중요도를 학습 기반으로 판단할 수 있도록 주의(attention) 메커니즘을 그래프 네트워크의 메시지 패싱 구조에 통합하였다. 이를 통해 경계와의 물리적 상호작용이 시스템의 전체 거동에 미치는 영향을 동적으로 판단하고, 지배적인 경계 조건에 더욱 민감하게 반응할 수 있도록 하였다.
제안한 MABGNN 모델은 다양한 정량적 평가 지표와 시각적 정성 평가를 통해 기존 BGNN 모델 대비 현저히 향상된 예측 성능을 보여주었다. 고정된 형상의 회전 드럼 시뮬레이션에서는 위치 오차(RMSE), 도메인 중첩도(IoU), 입자 혼합 엔트로피 등에서 모두 BGNN 대비 탁월한 결과를 보였으며, 시각적으로도 입자 퇴적 구조와 자유면의 곡률, 경계 부근의 압축 상태 등에서 실제 물리 현상과 일치하는 거동을 유지하였다. 뿐만 아니라, MABGNN은 학습 데이터에 포함되지 않은 조건에서도 강인한 일반화 능력을 보여주었다. 시간 도메인에서는 기존 학습 범위의 10배에 달하는 롤아웃 예측에서도 수치적 안정성과 물리적 구조를 유지하였고, 공간 도메인에서는 드럼의 두께를 3배로 증가시킨 경우 및 반경을 1.5배 확장한 경우에도 일관된 예측 정확도를 나타냈다. 또한, 회전 속도를 1.5배 빠르게 설정한 물리 파라미터 도메인 변화 실험에서도 자유면의 곡률과 입자 혼합 속도, 경계 유지력 측면에서 물리적으로 타당한 거동을 재현하였다.
이러한 결과는 MABGNN이 단순한 데이터 추세의 외삽을 넘어서, 물리 법칙에 근거한 동역학적 원리를 학습하고 이를 미지의 조건에도 성공적으로 적용할 수 있는 모델임을 입증한다. 특히, 기존 그래프 기반 모델의 구조적 한계를 극복하기 위해 설계된 다중 경계 연결 구조와 주의 메커니즘이 실제로 높은 표현력과 일반화 성능을 제공함을 실험적으로 보여주었으며, 이는 그래프 신경망을 이용한 물리 기반 시뮬레이션 분야에서 하나의 전환점이 될 수 있는 기여로 평가된다.
본 연구의 성과는 단순한 알고리즘적 개선을 넘어, 입자 시스템 시뮬레이션의 실제 응용 가능성 측면에서도 높은 활용 가치를 가진다. 예를 들어, 약물 혼합, 분말 처리, 건설 자재의 유동 시뮬레이션 등과 같은 입자 기반 산업 응용에서 기존의 수치 해석 기반 방법 대비 훨씬 빠르고 유연하게 다양한 설계 조건을 탐색하거나 제어 알고리즘을 학습하는 데에 본 모델이 활용될 수 있다. 또한, 향후에는 다상 유동이나 입자-유체 상호작용 문제로 확장하거나, 실제 실험 데이터를 활용한 도메인 적응 학습과 결합함으로써 보다 넓은 영역에서의 활용 가능성도 제시할 수 있다.
물론 본 논문이 제안한 모델에도 한계는 존재한다. 예를 들어, 극단적으로 얇은 경계 조건이나 비정형 경계 형상에 대해서는 여전히 예측 정확도의 감소가 관찰되며, 다양한 재질 특성을 가진 이질 입자 시스템에 대해서는 추가적인 타입 임베딩이나 재질 특이적 그래프 구조의 도입이 필요하다. 또한, 현재는 순전파 예측 기반의 모델로 설계되어 있으나, 향후에는 역문제 해석 또는 최적 제어 문제로의 확장이 가능한 구조 설계가 요구된다.
그럼에도 불구하고, 본 논문은 복잡한 경계 조건에서의 입자 시스템 시뮬레이션을 위한 새로운 모델링 패러다임을 제시하였으며, 이를 통해 물리 기반 시뮬레이션의 정확성, 안정성, 일반화 가능성을 동시에 확보할 수 있는 가능성을 실증하였다. 제안된 MABGNN은 물리 정보에 근거한 데이터 기반 시뮬레이션 모델로서, 향후 다양한 공학적 응용과 학문적 확장 가능성을 가진 기반 기술로 발전할 수 있을 것으로 기대된다.

This dissertation presents a novel graph neural network-based simulation framework, the Multi-surface Attention Boundary Graph Neural Network (MABGNN), developed to accurately and stably predict the behavior of granular systems under strongly confined boundary conditions. As the demand for numerical simulation of particle flows increases across both academic and industrial domains, there is a growing need for physically faithful yet computationally efficient models, especially in systems characterized by complex boundary geometries such as rotating drums or thin channels. In such environments, conventional graph-based simulators often fail to capture realistic particle dynamics due to their limited expressiveness in modeling particle–boundary interactions.
The widely adopted Boundary Graph Neural Network (BGNN) model constructs edges between each particle and its nearest boundary mesh node. While this structure is simple and efficient, it cannot model simultaneous multi-surface contacts that are common in real-world particulate systems. This limitation often leads to unstable predictions, structural collapse of the particle ensemble, and boundary leakage, especially in domains where boundary orientation and proximity change rapidly over time.
To address these issues, this research introduces two key architectural innovations. First, a multi-surface interaction mechanism is proposed to allow each particle node to simultaneously connect with multiple semantically meaningful boundary surfaces. This enables more accurate modeling of simultaneous contacts that define confined granular behavior. Second, an attention mechanism is integrated into the edge update process, allowing the model to learn the relative physical importance of each contact dynamically. This enables the model to emphasize physically dominant interactions while suppressing redundant or unstable ones, thereby enhancing the prediction’s physical consistency and numerical robustness.
The proposed MABGNN model was evaluated through a series of quantitative and qualitative experiments, demonstrating significant improvements over the BGNN baseline across various settings. On fixed-geometry simulations, MABGNN achieved lower root mean squared error (RMSE), higher intersection over union (IoU), and physically consistent entropy evolution. Visually, the model successfully replicated pile formation, boundary adherence, and surface curvature, whereas BGNN exhibited particle scattering and structural degradation.
Furthermore, MABGNN showed strong generalization capabilities across four previously unseen domains: extended rollout durations (10× longer than training), increased drum thickness (3×), expanded radius (1.5×), and higher rotational speed (1.5×). In all cases, MABGNN maintained trajectory accuracy, structural coherence, and physically plausible mixing dynamics, while BGNN suffered from numerical instability and breakdown of domain morphology. These results indicate that MABGNN not only interpolates over known configurations but also extrapolates across time, space, and physical parameters in a stable and interpretable manner.
The implications of this work extend to various practical applications, including simulation-based design of mixing equipment, real-time system optimization, and surrogate modeling for computationally expensive solvers. The proposed architecture is particularly suited for engineering scenarios involving strong boundary constraints or dynamic contact variation, such as granular flow in process engineering, powder transport, and geomechanics.
Despite its strengths, some limitations remain. The model may require further refinement under extreme geometric thinness or irregular boundaries. Moreover, the current model assumes homogeneous particle properties; future extensions to multi-material or deformable particles will require enriched edge and type embeddings. Experimental validation and integration with inverse design frameworks also present promising directions for future work.
In summary, this dissertation introduces a new architectural paradigm for graph neural network-based simulation of granular systems, with a focus on boundary-aware physical modeling. The proposed MABGNN framework offers a significant improvement in predictive accuracy, generalization, and physical interpretability, and lays the foundation for further developments in machine learning-based physical simulation.
