    기후 변화 대응과 늘어나는 에너지 수요로 인한 전 세계적인 재생에너지 전환은 효율적인 에너지 저장 기술의 중요성을 더욱 부각시키고 있다. 리튬 이온 배터리 응용 분야 중에서도 전기차는 급속 충전, 저온 성능, 안전성 측면에서 큰 도전에 직면해 있다. 이러한 문제들은 두 가지 핵심 요소를 통해 해결할 수 있다: 빠른 리튬 이온 확산을 가능하게 하는 최적화된 전해질 구성과 차세대 고체 전해질에서의 리튬 이온 확산 메커니즘에 대한 심층적 이해이다. 하지만 실험적 접근법은 전해질의 방대한 화학적 공간으로 인해 제약이 있으며, 본질적 요인이 성능에 미치는 효과를 분리하기 어렵다. 밀도범함수 이론과 고전적 포텐셜을 사용한 기존 계산 연구들은 높은 계산 비용과 제한된 범용성 때문에 한계가 있다. 본 학위논문은 기계학습 원자간 포텐셜이 리튬 이온 배터리 시스템의 다양한 전해질 범주를 효과적으로 모델링할 수 있음을 보여주며, 고체와 액체 배터리 전해질 구성 모두에서 계산 효율성과 화학적 정밀도의 균형을 맞추는 상호 보완적인 기계학습 원자간 포텐셜 접근법을 제시한다.

    두 번째 부분에서는 사전 훈련된 그래프 신경망 기반 기계학습 원자간 포텐셜인 SevenNet-0을 액체 전해질 시스템에 적용하여, 넓은 화학적 영역에 걸친 사전 훈련된 모델의 일반화 능력을 종합적으로 평가한다. 전해질의 방대한 화학적 공간은 광범위한 실험 연구를 현실적으로 어렵게 만들며, 기존 계산 접근법은 복잡한 용매화 환경을 모델링하고 다양한 화학 시스템에서 범용성을 유지하는 데 상당한 어려움을 겪는다. 무기 결정 재료로 학습되었음에도 불구하고, 이 모델은 영역 밖의 액체 환경에서 용매화 구조와 이온 확산도를 모델링하는 데 예상외의 좋은 정확도를 보여준다. 이후, 전해질에 대한 정확도를 높이기 위해 미세 조정과 다중 충실도 접근법을 통해 유기 시스템에 대한 정보를 추가하는 방법을 사용하였다.

    The global transition toward renewable energy sources, driven by climate change mitigation and rising energy demand, has made efficient energy storage technologies increasingly vital. Among Li-ion battery applications, electric vehicles face significant challenges with rapid charging capabilities, cold-weather performance, and operational safety. These challenges can be addressed through optimized electrolyte formulations that enable fast Li-ion transport and through deeper understanding of Li-ion transport mechanisms in next-generation solid-state electrolytes. However, experimental approaches are constrained by the vast chemical space of electrolytes and cannot easily isolate the effects of specific chemical factors on performance. Previous computational studies using density functional theory (DFT) and classical potentials have suffered from high computational costs and limited transferability. This dissertation demonstrates how machine-learning interatomic potentials (MLIPs) can effectively model diverse electrolyte categories in Li-ion battery systems, presenting complementary MLIP approaches that balance computational efficiency with chemical precision across both solid-state and liquid battery electrolyte configurations.

    The first part of the dissertation focuses on developing a Behler–Parrinello-type neural network potential (NNP) for Li₆PS₅Cl argyrodites. Previous experimental studies have shown that anion disorder substantially increases conductivity in argyrodites. However, the underlying diffusion mechanisms remain poorly understood due to factors such as grain boundaries and defects. Conventional DFT calculations face computational cost limitations when performing simulations on large supercells, which are required to model disorder in structures while capturing rare Li-ion diffusion events. This work performs statistical convergence tests to accurately predict ionic conductivity and activation energies for non-Arrhenius behavior. In addition, the effects of anion disorder on diffusion mechanisms are explained.

    The second part of the dissertation focuses on applying a pretrained graph neural network MLIP to liquid electrolyte systems. For liquid electrolytes, depending solely on experimental investigation of the vast chemical space is infeasible. On the other hand, conventional computational approaches face significant challenges in modeling complex systems and maintaining transferability. Therefore, a pretrained model, SevenNet-0, is utilized to evaluate the generalizability to liquid electrolyte systems. Although the model was trained on inorganic crystalline materials, it demonstrates unexpectedly good accuracy in modeling solvation structures and ion diffusivities in out-of-domain systems. To further enhance accuracy, fine-tuning and multi-fidelity approaches with datasets from organic systems are employed. Both methodologies significantly improve model precision and establish frameworks for future implementations.

    By investigating MLIPs for both solid and liquid electrolyte systems, this dissertation demonstrates how MLIPs can be powerful tools for electrolyte design. This provides guidelines for selecting between custom training for optimal accuracy versus pretrained models for broad applicability. For future research, MLIPs can contribute to finding new battery materials and accelerate electrolyte optimization for safer and more efficient Li-ion batteries.
