Spent nuclear fuel and its reprocessed byproducts are key targets for monitoring in a nuclear nonproliferation perspective. The neutrons and gamma rays emitted from these special nuclear materials can be utilized to characterize such materials through non-destructive assay techniques. However, conventional methods rely on extracting a limited set of features from detector response data, which results in the loss of much of the high-dimensional and complex information inherent in the original measurements. To overcome this limitation, this study focused on pyroprocessed ingots—byproducts of spent fuel reprocessing—proposes a novel artificial intelligence-based characterization methodology. This approach evaluates the machine learning applicability of neutron multiplicity and fission anisotropy, which have not been prominently utilized in traditional non-destructive assay, and directly applies artificial intelligence to neutron and gamma detector response data for more precise characterization.
First, the study analyzes whether neutron multiplicity and fission anisotropy exhibit sufficient sensitivity and variance with respect to changes in initial conditions and geometry of the ingots—critical prerequisites for effective machine learning. The results confirm that multiplicity vary clearly depending on ingots' initial conditions, with burnup identified as the most influential factor for improving prediction performance. In contrast, while fission anisotropy showed potential for distinguishing between spontaneous fission isotopes in an ideal full-coverage detector setup, its discriminative power was significantly diminished under realistic conditions involving only 12 detectors, primarily due to limitations in absolute detection efficiency. This issue persisted even after applying energy threshold, cross-talk correction, and time gate application.
Subsequently, the study enhances characterization performance by applying artificial intelligence models to detector data. The conventional neutron multiplicity point model for estimating fission rate showed incorrigible overestimated bias, particularly in predicting the effective mass of 240Pu. By introducing a machine learning-based correction model, the mean relative error was reduced from 17% to 2.4%. Furthermore, for estimating ingots' initial conditions—such as enrichment, burnup, and cooling time—our proposed deep learning model C2C-GRU was directly trained on sequential detector responses without post-processing. This significantly improved prediction accuracy, with the relative root mean square error for burnup reduced from 0.112 to 0.077. The analysis also identified prompt gamma rays emitted from the ingot as the most important contributor to this improvement.
In conclusion, this study empirically demonstrates the feasibility of applying artificial intelligence–based non-destructive assay techniques to pyroprocessed ingots and evaluates the applicability of neutron multiplicity and fission anisotropy for machine learning–driven analysis. By improving the accuracy of fission rate and initial condition estimations, the proposed approach highlights the potential of leveraging high-dimensional detector data for next-generation non-destructive characterization. This lays an important technical foundation for enhancing the precision and reliability of future nuclear material monitoring and verification systems.
