제품의 내구성을 평가하기 위해서 필드 하중 분석이 필수적이며, 고객의 사용 하중 분포와 비율을 포함한 고객 사용 프로파일의 정량화가 요구된다. 본 논문은 건설기계인 휠로더를 대상으로 주요 구조물에 대한 고객 사용 하중과 주요 작업 모드에 대한 고객 사용 비율을 예측하기 위한 데이터 기반 방법론을 제안한다.
데이터 기반 모델링을 위해 내부 시험장에서 대량의 학습 데이터를 실험적으로 수집하였다. 이를 위해 서로 다른 클래스에 속하는 총 6대의 휠로더를 선정하고, 필요한 물리량의 계측을 위한 센서카를 구축하였다. 필드의 다양한 작업 조건을 모사하기 위해 정형화된 표준 작업들로 구성된 통제 모드와 표준 작업들을 임의로 조합한 임의 모드로 테스트 시나리오를 설계하였다. 또한, 숙련된 운전자 4명을 대상으로 반복적인 작업을 수행하여 학습 데이터셋을 수집하였다.
휠로더의 구조 하중 예측 모델 개발을 위해 변형량 대신 압력과 가속도를 활용하는 데이터 기반 방법론을 제안하였다. 프론트와 프레임에 작용하는 구조 하중을 추정하기 위해 실린더 압력과 프레임 가속도로부터 하중 특징을 도출하고, 이를 기반으로 하중 특징과 하중 인자 간의 상관성을 분석하였다. 이러한 관계를 일반화하기 위해 데이터 샘플링과 지도 학습 기반 기계학습 기법을 적용하여 프론트와 전/후방 프레임에 대한 학습을 수행하였다. 모델 테스트 결과, 하중 예측 성능이 성공적으로 검증되었다. 또한, 휠로더의 온보드 센서 정보에서 도출된 하중 특징과 SHAP 기반 특징 선택 기법을 활용하여 운전자 뿐만 아니라 장비 클래스에 대한 모델의 일반화 성능을 효과적으로 향상시켰다.
휠로더의 작업 모드 분류 모델 개발을 위해 장비의 온보드 센서 데이터를 활용한 타임스텝 동작 분할 방법론을 제안하였다. 사전 테스트를 통해 도메인 지식에 기반한 유의미한 특징들을 선정하고, 데이터 샘플링 기법을 활용하여 데이터셋을 구성하였다. 지도 학습 기반 딥러닝 기법을 적용하여 모델을 학습한 후, 모델 테스트를 통해 작업 모드 분류 성능을 성공적으로 검증하였다. 또한, 장비 클래스 간 일반화 성능을 확인하고, 데이터 증강 기법을 적용함으로써 운전자에 대한 모델의 일반화 성능을 향상시켰다. 마지막으로, 특징 및 모델 최적화를 통해 기존 특징 수의 약 30%만으로 기존과 유사한 예측 성능을 달성하였고, 연산 부하 절감과 학습 속도 개선을 실현하였다.
개발된 모델의 필드 적용 가능성을 검증하기 위해 국내 석산에서 센서카 한 대를 활용하여 실제 고객 사용 데이터를 수집하였다. 수집된 데이터를 바탕으로 구조 하중과 작업 모드에 대한 예측을 수행한 결과, 작업 환경의 차이와 비정형 작업 조건을 고려할 때 제안된 방법론이 필드 적용에서 유의미한 성능을 발휘함을 확인하였다. 본 연구에서 개발된 휠로더의 하중 예측 및 작업 모드 분류 방법론은 필드에서 고객 하중 분석 및 정량화를 통해 제품 검증 역량을 향상시키는데 기여할 것으로 기대된다.

Field load analysis is essential for evaluating product durability, requiring the quantification of customer usage profiles, including the distribution and proportion of usage loads. This paper presents a data-driven methodology to predict customer usage loads on major structures and customer usage ratios for work modes, focusing on wheel loaders in the construction machine.
To develop the data-driven model, a large volume of learning data was experimentally collected at an in-house test facility. Six wheel loaders of different classes were selected, and sensor cars were constructed to measure the required physical quantities. To simulate diverse field working conditions, a test scenario was designed, comprising a controlled mode with standardized work modes and a random mode with arbitrary combinations of standard work modes. Additionally, learning datasets were collected by conducting repetitive tasks with four experienced operators.
For load prediction, a data-driven methodology was proposed that utilizes pressure and acceleration instead of strain measurement. Load features were extracted from cylinder pressures and frame accelerations to estimate structural loads acting on the front and main frame. The correlations between these features and the load were analyzed. To generalize these relationships, data sampling techniques and supervised machine learning algorithms were applied, followed by training for the front and front and rear frame. The model test results successfully verified the load prediction performance. Furthermore, by using load features derived from the onboard sensor data and applying SHAP-based feature selection techniques, the generalization performance of model was improved not only for operators but also for machine classes.
For work mode classification, a time-step action segmentation methodology using onboard sensor data was proposed. Significant features were selected based on domain knowledge through preliminary tests, and a dataset was constructed using data sampling techniques. The model was trained using supervised deep learning methods and successfully verified through performance testing in work mode classification. Additionally, the generalization performance across different machine classes was evaluated, and the generalization capability of the model for operators was enhanced through the application of data augmentation techniques. Lastly, through feature and model optimization, a prediction performance comparable to the original model was achieved using only about 30% of the initial features, thereby reducing computational load and improving training efficiency.
To validate the field applicability of the developed model, actual customer usage data was collected using a wheel loader sensor car at a domestic quarry. Based on the collected data, predictions were made regarding structural loads and work modes. The results demonstrated that the proposed methodology exhibits meaningful performance in field applications, even when accounting for variations in working environments and non-standard operating conditions. The load prediction and work mode classification methodology for wheel loaders developed in this study is expected to contribute to enhancing product verification capabilities by enabling load analysis and quantification in the field.
